SDC-LoRA: Singular-Subspace Drift Controlled LoRA to Mitigate Knowledge Forgetting

Paper · 2026 · Geyuan Zhang, Xiaofei Zhou, Shihao Liu et al.

Summary

Fine-tuning LLMs with LoRA often erodes general knowledge, which is thought to sit mainly in the principal singular subspace of the pretrained weight W0. Methods such as MiLoRA start the adapters in the minor subspace. The authors show that this protection fades during training: update energy gradually migrates toward principal directions. They name this effect Singular-subspace Drift (SD) and trace it to gradients whose principal-subspace projections are much stronger than their minor ones. Their method, SDC-LoRA, initializes LoRA in the minor subspace. At every step it splits the gradients into principal and complementary parts and shrinks only the principal part. The shrinking uses a Spectral Calibration factor γ_sc, computed once from a sampled full gradient. A theorem argues this keeps the principal-to-minor energy ratio from increasing. On LLaMA-3.1-8B-Instruct and Qwen2.5-7B-Chat fine-tuned on MetaMathQA and CodeFeedback, the method improves retention on MMLU, TruthfulQA and HellaSwag. GSM8K and HumanEval accuracy stays the same or improves slightly. This offers a cheap way to specialize models while preserving their prior abilities.

Key points

  • The authors track drift with a contrastive energy ratio R_t in [−1, 1], which compares the principal and minor projection energies of ΔW. With LoRA, PiSSA, LoRA-One and MiLoRA, R_t rises during MetaMath training (PiSSA stays near 1), while SDC-LoRA suppresses this rise.
  • The reported gains are given as Llama/Qwen pairs:
    • MetaMathQA: GSM8K +0.12/+0.36 and MMLU +2.14/+1.87.
    • CodeFeedback: HumanEval +1.09/+0.86 and MMLU +1.52/+2.69.
    • Other benchmarks: TruthfulQA and HellaSwag also improve by about 0.8–2.8 points.
  • In the ablation with LLaMA-3.1-8B-Instruct on MetaMath (rank 16), SDC-LoRA reaches 79.38 GSM8K and 63.37 MMLU, compared with 78.95 and 59.07 for MiLoRA.
    • Removing principal gradients entirely (γ_sc = 0) preserves knowledge but lowers GSM8K.
    • A random γ_sc weakens retention.
  • The learned γ_sc values vary by layer, module type and task. Middle layers and W_down/W_up/W_o receive weaker suppression.
  • Training loss matches the baselines. SDC-LoRA also beats MiLoRA's learning-rate trade-off frontier.
  • Limitations include a one-off full gradient plus SVD cost, theory that relies on small-step linearization, and evaluation on only two backbones and two task types.
