Scaling Law for Multimodal Large Language Model Supervised Fine-Tuning
Paper · 2026 · YiFan Zhang, Tao Yu, Feng Li et al.
Summary
The paper addresses a gap in multimodal LLM development: there is no established way to estimate how much supervised fine-tuning (SFT) data a vision-language model needs for a given model size or performance target. The authors argue theoretically that a simple compute-optimal frontier, like the one known for text-only LLMs, is hard to derive for MLLM SFT. Many interacting factors drive the outcome, including model size, LLM pre-training tokens, base-model ability and multimodal SFT tokens.
They therefore fit two complementary laws:
- From-scratch law: for settings where pre-training data volume is known.
- Pre-trained law: for open community LLMs such as LLaMA or Qwen, where pre-training data is undisclosed. It replaces the data term with the base model's benchmark scores.
A third law links training loss to downstream accuracy. All fits rely on a large testbed of checkpoints evaluated on many multimodal benchmarks.
The work yields concrete recommendations for allocating pre-training versus SFT tokens. It also shows that a strong base LLM matters more than model size or additional SFT data. Finally, it shows that loss can stand in for costly benchmarking.
Key points
- Testbed: 60 models spanning 50M–8B parameters, 1,560 checkpoints in total, each evaluated on more than 10 MLLM benchmarks. The main experiments use a LLaVA 1.6-style setup, and the fitted parameters stay similar under an alternative configuration (e.g., F ≈ 4.4).
- Optimal allocation: For a 1B model, the suggested budget is about 20.2B text pre-training tokens plus 9.2B image-text SFT tokens. SFT data scales nearly linearly with pre-training data: D_SFT ≈ 0.48 × D_pretrain^0.98.
- Base-model dominance: P_base, a weighted combination of NLI, Commonsense and Reasoning scores, outweighs N and D_SFT. Commonsense ability has the largest effect, reasoning is second, and NLI matters least.
- Task-specific sensitivity: OCR depends heavily on SFT data (H = 146.2). Real-world perception gains more from model scaling (δ = 0.13).
- Loss as a predictor: Cumulative training loss predicts accuracy with R² = 0.98, a result supported by bootstrap and cross-validation checks. Stated limitations are the lack of a theoretically optimal Pareto frontier and no coverage of speech or video.
