Learning from Evolving Training Dynamics: An Entropy-Maximizing Data Curation Strategy for LLM Supervised Post-Training

Paper · 2026 · Mengxiang Zhang and Lingyuan Liu

Summary

Curriculum learning for supervised post-training of LLMs usually ranks examples once, using a single static difficulty score such as Perplexity. The authors show three problems with this. Rankings from different metrics barely agree. A sample's difficulty shifts as the model trains. Fixed easy-to-hard ordering shrinks semantic diversity.

Their framework, EVO-Curate, runs in M stages. In each stage, an Adaptive Dynamics Measurer rescores the entire dataset with the current model, combining present loss with how that loss has varied over training. An Evolutionary Sampling Scheduler then uses an entropy-maximizing probabilistic rule to draw a growing, non-repeated subset, favouring useful samples while keeping coverage broad.

Experiments span instruction following, math reasoning and code generation, under both SFT and knowledge distillation. EVO-Curate beats standard training and static curricula, with relative gains of up to roughly 10% and modest extra compute. This makes it a practical, model-agnostic addition to post-training pipelines.

Key points

  • Models and losses tested:
    • SFT on Qwen2.5-0.5B, OpenLLaMA2-3B and GPT2-0.1B.
    • KD with teacher→student pairs Qwen2.5-1.5B→0.5B, OpenLLaMA2-7B→3B and GPT2-1.5B→0.1B.
    • KD losses KLD, RKL, JSD, TVD and SKL, evaluated by ROUGE-L on five instruction-following benchmarks.
  • Speed on Dolly-15k (GPT2-0.1B): KD with EVO-Curate reaches ROUGE-L 26.88 after 271.5 minutes. Plain KD peaks at 24.96 after 290 minutes.
  • Overhead: rescoring the dataset adds about 15–20% to training time. M = 4 stages is reported as the best trade-off between gains and cost.
  • Baselines beaten: EVO-Curate outperforms static Traditional Curriculum Learning (TCL) and Difficulty Aware KD (DA-KD) in both SFT and KD settings.
  • Limitations:
    • Gains are smaller on math and code, where token-level loss is a weaker difficulty signal.
    • Repeated full-dataset passes may not scale well to million-example corpora.
