CriticSearch: Fine-Grained Credit Assignment for Search Agents via a Retrospective Critic

Paper · 2026 · Yaocheng Zhang, Haohuan Huang, Zijun Song et al.

Summary

Search agents are LLMs that call a search engine across several reasoning turns. They are usually trained with reinforcement learning on a single outcome reward, so every query in a trajectory gets the same credit whether it helped or not. This sparse signal makes training slow and unstable, and it can cause reward collapse. CriticSearch adds dense, turn-level feedback through a "retrospective critic."

After a rollout finishes, a frozen critique LLM reviews each search action. It sees privileged information the policy never has: the full trajectory and the gold answer. It gives each action a binary score. These turn-level rewards are combined with the usual group-normalized global advantage from GRPO. The method needs no extra rollouts and no step-level annotations.

On the multi-hop QA benchmarks HotpotQA, 2Wiki, MuSiQue and Bamboogle, CriticSearch beats both sparse-reward and dense-reward baselines. It also converges faster and trains more stably. The work shows that hindsight judgments from an LLM are a cheap and general alternative to Monte Carlo credit estimation.

Key points

  • Reported gains over dense-reward baselines (e.g., StepSearch, ARPO) are 16.7% with Qwen2.5-3B-Base and 6.7% with Qwen2.5-7B-Base policies.
  • The ablation with the 7B policy gives these average scores:
    • outcome-only training (CriticSearch-Sparse): 35.3
    • critic without the gold answer (CriticSearch-NG): 36.6
    • full CriticSearch: 38.4
  • Against human labels on 20 sampled trajectories, critic agreement grows with model strength. Gemini-2.5-pro reaches about 0.81. Using the outcome reward as a per-turn score is lowest, at about 0.32.
  • Qwen3-30B-A3B-Instruct-2507 as critic outperforms both Monte Carlo estimation and a same-size Qwen2.5-Instruct critic, and it produces a better-trained policy.
  • The limitations are extra memory and some compute overhead relative to GRPO. Testing so far covers only search tasks with few reasoning turns.
