StepSearch: Igniting LLMs Search Ability via Step-Wise Proximal Policy Optimization
Paper · 2025 · Xuhui Zheng, Kang An, Ziliang Wang et al.
Summary
RL-trained search agents such as Search-R1, ReSearch and ZeroSearch usually learn only from a final-answer reward. That signal is too sparse to teach good intermediate querying for complex multi-hop QA. StepSearch addresses this with a PPO variant called StePPO, which adds supervision at each search round. Every think→search round gets token-level rewards. These combine an information-gain term for newly useful retrieved documents with a penalty for redundant retrieval. They sit alongside a global reward built from answer F1 and search-keyword F1. Retrieved text is masked from the gradient.
To supply reference trajectories, the authors built a pipeline on top of MuSiQue:
- GPT-4o expands the decomposed questions into sub-question–answer pairs.
- Several search queries are generated for each step.
- Queries are kept only if they return valid results in most of the search sources tested.
Trained on just 19k examples, Qwen2.5 3B and 7B models beat global-reward search-RL baselines by 11.2 and 4.2 absolute points. This suggests that fine-grained process rewards make deep-search training more data-efficient.
Key points
- Released resource: about 60k filtered sub-question search keywords derived from MuSiQue. Queries were checked against sources such as Google, Bing and Wiki-18, and a query was kept only if at least ⌈M/2⌉ of the M sources returned valid results.
- Reward design: step-wise rewards (information gain G_t minus redundancy penalty P_t) are placed on the last token of each search round. The global reward (answer F1 plus search-key F1) goes on the final token, and malformed outputs score zero.
- Online generalization: with SerperAPI and k=3 documents, the 3B StePPO model sometimes outperformed the 7B model run on local retrieval, for example on 2Wiki and Bamboogle.
- Search efficiency on the MuSiQue dev set: StepSearch-base 7B reached 85.48% target-document recall and 67.75% effective searches, the best among the compared systems.
- Stated limitations: evaluation covers only text QA at modest model scales. The method depends on high-quality step-level data and tends to weaken the model's self-reflective reasoning.
