MLRC-Bench: Can Language Agents Solve Machine Learning Research Challenges?
Paper · 2025 · Yunxiang Zhang, Muhammad Khalifa, Shitanshu Bhushan et al.
Summary
Current ways of testing LLM research agents fall short in two directions. End-to-end pipelines such as AI Scientist are graded by LLM judges, with no solid baseline to compare against. Kaggle-style engineering benchmarks are easy to score but seldom require new ideas. MLRC-Bench fills this gap by turning recent ML conference competitions into standardized, agent-agnostic environments. Each task comes with a description, refactored starter code containing a baseline, data splits and fixed runtime and GPU limits. Agents must invent and implement a method at the repository level, and their output is scored with the competition's own objective metrics. Results are reported relative to the baseline and the best human entry.
Across frontier LLMs and several agent scaffolds, progress is small. The strongest setup recovers under a tenth of the distance from the baseline to the winning human score. LLM-judged novelty also tracks real performance poorly, which casts doubt on subjective evaluation of AI-generated research. The benchmark is meant to grow as new competitions appear.
Key points
- The initial suite has 7 tasks drawn from NeurIPS 2022–2024, an ECCV 2024 workshop and KDD Cup 2023. They include LLM Merging, Backdoor Trigger Recovery, Temporal Action Localisation, Rainfall Prediction, Machine Unlearning, Next Product Recommendation and Cross-Domain Meta Learning. Compute limits range from 0.5 to 3.5 hours and from 16 to 48 GB of GPU memory.
- The top performer, gemini-exp-1206 with the MLAB scaffold, achieved a 9.3% relative improvement toward the human best.
- Agents repaired only 17.2% of the runtime errors they hit, showing that self-debugging in multi-file codebases is hard.
- Llama 3.1 405B Instruct gave the best cost/benefit balance, outperforming GPT-4o and Claude 3.5 Sonnet at lower API cost.
- In pass@k scaling experiments (CoI-Agent ideas plus up to 8 MLAB trials), human-written ideas helped more than AI-generated ones. Under a fixed budget, splitting effort between more ideas and more trials per idea made no significant difference.
