SageAttention: Accurate 8-Bit Attention for Plug-and-play Inference Acceleration

Paper · 2024 · Jintao Zhang, Jia Wei, Haofeng Huang et al.

Summary

At long sequence lengths, attention's quadratic cost makes it the dominant source of latency in transformers. Prior quantization work, however, has mostly targeted linear layers, and FP8 attention in FlashAttention3 runs only on Hopper GPUs and loses accuracy. SageAttention is a post-training, plug-and-play 8-bit attention kernel that requires no retraining. The authors found that naive 8-bit quantization fails for two reasons: K has strong channel-wise outliers, and quantizing P and V to 8 bits is not reliably accurate. Their fixes are as follows:

  • Q and K are quantized to INT8, after K is smoothed.
  • The PV product stays in FP16 but uses a fast FP16 accumulator.
  • A per-layer procedure picks the fastest kernel variant that remains accurate.

The kernels are written in Triton for RTX4090 and RTX3090 and follow FlashAttention-style tiling. They run about 2.1× faster than FlashAttention2 and 2.7× faster than xformers. End-to-end quality is essentially unchanged across LLMs, image and video generation, and image classification. This matters because it brings attention speedups to widely available consumer GPUs.

Key points

  • Failure of direct 8-bit attention: Llama2 falls to 25.5% on MMLU, which is random-guess level, and Unidiffuser outputs fully blurred images. Both INT8 and FlashAttention3's FP8 show this problem.
  • Throughput: about 340 TOPS on RTX4090 at headdim 64 and 128, which is roughly 52% of the INT8 theoretical peak. FlashAttention2 peaks at 165 TOPS, and FlashAttention3 reaches 490 TOPS only on Hopper.
  • INT8 versus FP8 for Q·K: cosine similarity is 99.54% for INT8, compared with 92.83% for E4M3 and 77.95% for E5M2.
  • Effect of smoothing K: with per-token quantization, attention cosine similarity rises from 62.24% to 99.47%. The overhead is under 0.2%.
  • RTX3090 speedups: gains range from 1.81× (CogvideoX) to 5.38× (TIMM versus Torch attention) and average about 2.7×. On RTX4090, a CogvideoX video takes 67 s instead of 90 s.

Interesting ideas

  • I1. Remove shared outliers before quantizing: subtracting a component common to all tokens from K eliminates its channel-wise outlier without changing the softmax result. Checking whether an operation is invariant to a shift, and using that to drop outliers cheaply, could help when quantizing other operators.
  • I2. Choose the number format for the hardware and data: INT8 beats FP8 in both speed and precision on consumer GPUs. Measuring each format per operation, rather than assuming FP8 is better, is a good habit for any low-precision deployment.
  • I3. Mix precision within one operator: only the matmul that tolerates 8-bit input (QKᵀ) is quantized, while PV stays in FP16 with a cheaper accumulator. Partial quantization like this can capture most of the speed while avoiding the fragile step.
  • I4. Select kernels per layer: each layer is assigned the fastest implementation that still meets an accuracy check. This lets a model use aggressive kernels wherever they are safe.
  • I5. Evaluate at the tensor level: measuring cosine similarity, relative L1 and RMSE on real Q/K/V tensors lets design choices be tested cheaply before running full end-to-end benchmarks.
