Behavior Knowledge Merge in Reinforced Agentic Models

Paper · 2026 · Xiangchi Yuan, Dachuan Shi, Chunhui Zhang et al.

Summary

The paper tackles how to combine several agents, each specialized through reinforcement learning (RL), into one generalist model without further training. Joint multi-task on-policy RL is costly because it needs every environment and reward model running in parallel, so post-hoc merging is an attractive alternative. Standard methods such as Task Arithmetic, TIES-Merging and DARE, however, were built for supervised fine-tuning, which produces dense updates. The authors find that RL task vectors behave differently: they are sparse, vary widely in density across tasks, and overlap only partly. Global averaging therefore divides each task's unique updates by the number of merged models and weakens specialized behaviors. Their method, Reinforced Agent Merging (RAM), separates parameter regions changed by several agents from those changed by only one. It averages the shared regions and keeps and rescales the unique ones according to their distribution. Tested on coding, tool-use and memory agents, RAM and its variant RAM+ beat the merging baselines. On most tasks, the merged model even outperforms the original specialists.

Key points

  • The three RL agents analyzed are CURE (coding), ToolRL (tool use) and MemAgent (long-context memory), all fine-tuned from Qwen2.5-7B-Instruct.
  • Task-vector density differs sharply between agents: about 3.2% of parameters change for the coding agent, versus 46.2% for tool use and 54.3% for memory. An element counts as unchanged if it differs by at most 1e-5.
  • Across 12 tasks in 3 domains, RAM/RAM+ achieve the best average score and the top result on 9 of the 12 tasks. Benchmarks include LiveCodeBench, LiveBench and RULER (HotpotQA, SQuAD), and the baselines include Fisher, TIES and DARE variants.
  • The approach also generalizes to a Llama base with ZeroSearch, a math reasoning agent and ToolRL. There, the merged model beats the specialists in the Math and Tool domains and keeps Search ability where baselines lose it.
  • Stated limitations:
    • Experiments cover only 3B–7B models.
    • The rescaling assumes isotropic parameter importance.
    • Collisions in shared parameters may grow when many more agents are merged.
