A Survey of Reinforcement Learning for Large Language Models under Data Scarcity: Challenges and Solutions

Paper · 2026 · Zhiyin Yu, Yuchen Mou, Juncheng Yan et al.

Summary

RL-based post-training is now a leading way to strengthen reasoning in LLMs, but it is held back by data scarcity in two forms. External scarcity is the shortage of costly supervision such as human feedback, preference labels, expert annotations and step-level reasoning traces. Internal scarcity comes from limits on what the model can generate itself, including rollout counts, trajectory lengths and exploration budgets. The authors argue that adding more data or compute gives diminishing returns, and they present what they call the first systematic review of this area. They organize the literature into a bottom-up, three-level taxonomy:

  • data-centric methods that prune, synthesize or compress training data;
  • training-centric methods that make rollouts, reward signals and policy updates more efficient;
  • framework-centric methods in which a single model, an asymmetric pair of agents, or a group of agents generates its own tasks and feedback.

For each category the survey describes representative works and weighs their strengths and weaknesses. It concludes that handling scarcity requires all three levels together and gives researchers a map of the design space and its open problems.

Key points

  • Data-centric level: covers offline, online and fine-grained pruning (e.g., LIMR, LearnAlign, EAS, LSPO, MoPPS, BOTS). It also covers static, dynamic and hard data synthesis, and compression at the token, step, trajectory or dataset level (e.g., One-shot RLVR).
  • Training-centric level: has three parts.
    • Trajectory generation: guided exploration and selective rollouts.
    • Reward engineering: consistency- or entropy-based and process-based internal rewards (e.g., TTRL, RENT, Intuitor, CoVo).
    • Policy optimization: sample-efficient objectives and replay mechanisms.
  • Framework-centric level:
    • Self-evolving systems (e.g., SeRL, AZR).
    • Asymmetric co-evolution, either collaborative or adversarial (e.g., SPAG, SPC, GAR, SSR).
    • Multi-agent evolution through competitive games or cooperating roles (e.g., SPIRAL, Vision-Zero with "Who is the Spy", SPELL, MAE).
  • Open challenges:
    • Internal rewards can be noisy and are prone to reward hacking or model collapse.
    • Most methods are limited to verifiable domains such as math and code, so unverifiable and open-ended tasks remain largely unaddressed.
    • Self-play carries safety risks, such as amplifying biases present in the seed data.
  • Publication details: ACL 2026 (Long Papers), pp. 22823–22846. The curated paper list is on GitHub at YuZhiyin/Data-Efficient-RL.
