Summary
Autoregressive LLMs produce text strictly left to right. This limits them on tasks that need global planning or must satisfy constraints. Diffusion language models could avoid this, but earlier ones scored clearly below strong AR systems such as Qwen2.5. The authors present Dream 7B, a 7-billion-parameter discrete (masked) diffusion model. It starts from a random mix of [MASK] tokens and fills in the sequence over several denoising rounds, using full bidirectional attention.
Two training choices drive the results:
- AR-based initialization: the model starts from a pretrained AR checkpoint and keeps the AR "shift" convention, so hidden state i still predicts token i+1.
- Context-adaptive, token-level noise rescheduling: the noise schedule is adjusted per token, and training uses a continuous-time weighted cross-entropy objective.
Dream 7B beats earlier diffusion LLMs such as LLaDA 8B on general, math and coding benchmarks and roughly matches Qwen2.5 7B. It does better on planning-style problems. It can also generate in any order, fill in gaps, and trade speed for quality, which makes diffusion a credible alternative paradigm for LLMs.
Key points
- Released models: Dream-Base and Dream-Instruct (7B), from The University of Hong Kong and Huawei Noah's Ark Lab. Demos are at hkunlp.github.io/blog/2025/dream/.
- Benchmarks: MMLU, ARC-C, RACE, GSM8K, MATH, GPQA, HumanEval and MBPP. Planning tasks are Countdown, Sudoku and Trip planning.
- Baselines: LLaDA 8B (diffusion), plus Qwen2.5 7B and LLaMA 3 8B (AR).
- Speed vs. quality: the number of diffusion timesteps sets the trade-off. On Countdown, 5–20 steps make Dream both faster and more accurate than Qwen2.5 7B.
- Training method: the shift-operation initialization comes from DiffuLLaMA. The objective is a masked-token cross-entropy weighted by w(t), e.g. 1/t, which bounds the negative log-likelihood (ELBO).
