Towards Self-Evolving Agents: Enabling Autonomy through Interactive Experience Refinement

Paper · 2026 · Cheng Yang, Xuemeng Yang, Licheng Wen et al.

Summary

LLM-based agents usually stay fixed once deployed. They cannot learn from earlier attempts, which hurts them on long, multi-application productivity tasks that may take over a hundred steps. The authors propose MUSE (Memory-Utilizing and Self-Evolving), a framework that improves at test time without any fine-tuning. A Planning-Execution agent splits each task into sub-tasks and works through them with a minimal toolset. A Reflect agent then judges every attempt on its own, with no human in the loop. Successful runs become reusable procedures, and failed ones are diagnosed and sent back for replanning. After a full task, broader lessons are consolidated into a hierarchical memory with three layers: Strategic, Procedural, and Tool. The memory is kept as plain text, so it is not tied to one LLM and can be handed to a different model. On TheAgentCompany (TAC) benchmark, MUSE with Gemini-2.5 Flash sets a new state of the art. Its results keep improving as experience accumulates, pointing toward agents that learn on the job.

Key points

  • New SOTA on TAC: MUSE scores 51.78% using Gemini-2.5 Flash, roughly a 20% relative gain over the previous best system.
  • Three memory layers:
    • Strategic Memory stores dilemma–strategy pairs in the system prompt.
    • Procedural Memory is an SOP library indexed by application, which the agent queries on demand.
    • Tool Memory combines static tool descriptions with dynamic hints returned after each tool call.
  • Ablation on the 18-task subset T_cl:
    • Checkpoint score rises from 63.53% (PE agent only) to 66.12% (adding Reflect) and 73.18% (adding Memory).
    • Partial score rises from 43.21% to 55.85% and then 64.61%.
    • Memory adds only about 98 seconds per task.
  • Memory transfers across models: DeepSeek-V3 improves from 34.12% to 50.59% checkpoint score when given memory accumulated by another model.
  • Comparison with OpenHands: MUSE with Gemini 2.5 Pro reaches 80.00%, versus 65.39% for OpenHands with the same model. Even MUSE's Flash variant outperforms that baseline.
