EVOTOOL: Self-Evolving Tool-Use Policy Optimization in LLM Agents via Blame-Aware Mutation and Diversity-Aware Selection
Paper · 2026 · Shuo Yang, Caren Han, Xueqi Ma et al.
Summary
LLM agents that call external tools often fail in long, multi-step tasks. Feedback usually arrives only at the end, so it is hard to tell which step caused a failure. Prior optimizers either rewrite the whole agent prompt, which can break unrelated behaviors, or tune a single component and miss errors that spread between stages. EVOTOOL tackles this with gradient-free evolutionary search over the agent's prompt specifications, while the LLM weights stay frozen. The policy is split into four modules: Planner, Selector, Caller and Synthesizer. In each generation, a blame step reads intermediate tool diagnostics to find the module most likely at fault. Only that module is then rewritten using natural-language critique. A diversity-aware selection rule keeps a pool of variants that win on different instances, rather than keeping only the best average performer. On ToolBench, RestBench, τ-Bench and BFCL, EVOTOOL beats strong baselines by more than 5 points with both GPT-4.1 and Qwen3-8B. It also uses tokens more efficiently and transfers across datasets and models. This makes it a practical way to improve agents without retraining them.
Key points
- Selective updates. Each child candidate changes exactly one module relative to its parent. It joins the population only if it beats the parent on a training mini-batch.
- Selection ablation (average across the four benchmarks): EVOTOOL scores 57.0, compared with 52.7 for Top-k, 52.0 for Greedy and 48.6 for a static policy. The largest gains are on τ-Bench and BFCL.
- Error diagnosis on ToolBench: module-attributed errors fall from 77.6% to 38.0% within three iterations, mostly from fixes to the Caller and Selector, and reach 20.2% by iteration 8.
- Error diagnosis on τ-Bench: errors fall to 33.3% but remain dominated by Planner failures.
- Transfer and availability:
- A policy evolved with Qwen3-8B improves GPT-4.1 by 4.7 points.
- A GPT-4.1-evolved policy improves Qwen3-8B by 12.7 points.
- Code is published on GitHub (SYang2000/ACL_2026_EvoTool).
