Learning Interactive Real-World Simulators

Paper · 2023 · Sherry Yang, Yilun Du, Kamyar Ghasemipour et al.

Summary

The paper asks whether a generative model can serve as an interactive simulator of the real world, producing the visual result of an action applied to a scene. The authors present UniSim, a video diffusion model with a single action-in-video-out interface. Each training source covers a different part of the world: LAION images supply objects, Ego4D, EPIC-KITCHENS and Something-Something V2 supply human activity, Bridge Data and RT-1 data supply robot behaviour, Matterport3D supplies camera motion, and Habitat/HM3D and Language Table supply simulated control. Every action type becomes T5 embeddings joined with discretized controls. The simulator predicts the next frames from recent frames plus an action, and it is rolled out step by step to produce long, consistent interactions. Using only simulated experience, the authors train vision-language policies, RL control policies and video captioning models, and these transfer zero-shot to real settings. This narrows the sim-to-real gap and allows synthetic data for events that are rare or dangerous to record.

Key points

  • Action conditioning relies on classifier-free guidance. History is limited to a few recent frames, which are concatenated with the noise input. Previous actions are not included in the history.
  • In the dataset ablation (FVD/CLIP, 1024 test samples), the full mix scores 211.30/22.63. Internet-only data scores 219.62/22.27. Dropping internet data scores 307.80/21.99, the largest drop.
  • Scaling the model from 500M to 1.6B to 5.6B parameters lowers FVD from 277.85 to 224.61 to 211.30. Gains shrink at the largest size.
  • For RL, a PaLI 3B model is first fine-tuned to estimate the number of steps remaining until the goal. Changes in that estimate serve as the reward for REINFORCE training inside the generated environment.
  • For captioning, UniSim generated 4 videos for each of 30,740 ActivityNet Captions training texts, giving four times the original data for fine-tuning PaLI-X.
