Mitigating Catastrophic Forgetting in Target Language Adaptation of LLMs via Source-Shielded Updates
Paper · 2026 · Atsuki Yamaguchi, Terufumi Morishita, Aline Villavicencio et al.
Summary
Instruct LLMs perform poorly in languages that are rare in their training data, and adapting them is difficult. Instruction-tuning data for such languages is scarce or expensive. Continual pre-training (CPT) on plain target-language text, the usual alternative, tends to erase chat, instruction-following and safety skills (catastrophic forgetting). Earlier fixes applied after training, such as weight merging, did not solve this. The authors propose Source-Shielded Updates (SSU), which protects source knowledge before CPT begins. A small English calibration sample is scored with a pruning-style importance metric such as Wanda. These element-level scores are combined per column, and the top-ranked columns of each weight matrix are frozen, which keeps entire feature transformations intact. CPT on unlabeled target-language text then updates only the remaining weights. The method was tested on five typologically diverse languages with 7B and 13B models. SSU keeps English abilities nearly intact while matching or beating full fine-tuning in the target language. This offers a low-cost route to extend instruct models to under-resourced languages without labeled instruction data.
Key points
- Average drop on monolingual English (source) tasks is 3.4% (7B) and 2.8% (13B) with SSU. Full fine-tuning loses 20.3% and 22.3%.
- On target-language benchmarks, SSU outperforms full fine-tuning on all of them for 7B models and on most of them for 13B models.
- SSU is compared mainly with the selective-update baselines HFT and GMT, with LoTA and S2FT in the appendix. It uses a 50% freezing ratio borrowed from HFT and roughly 500 source calibration samples.
- On AE2, 7B SSU models produce code-mixed answers in about 1.0% of cases, compared with 6.4% for HFT and 16.9% for GMT. Code-mixing was detected with GlotLID, using an English-confidence threshold of 0.9. An Igbo-trained example illustrates the difference.
- Ablations support two design choices: column-wise freezing beats element-wise freezing, and scoring parameters on source data beats random or target-driven selection. Code and models are released at github.com/gucci-j/ssu.
