Towards Large Reasoning Models: A Survey of Reinforced Reasoning with Large Language Models

Paper · 2025 · Fengli Xu, Qianyue Hao, Zefang Zong et al.

Summary

LLMs are increasingly used for complex, multi-step reasoning. Training them on human-written step-by-step solutions is very expensive. This survey, by a team mostly from Tsinghua University, describes how the field is moving toward "large reasoning models": systems whose reasoning improves when more compute is spent, both in training and at inference. It first reviews the standard LLM pipeline (pretraining, SFT, RLHF/DPO alignment) and prompting methods such as chain-of-thought and tree-of-thought. It then groups the literature into three areas. The first is building training data automatically, using LLM-driven search with external verification instead of human annotation. The second is reinforcement learning, especially Process Reward Models (PRMs) that score each intermediate step. The third is test-time scaling, where PRM-guided search lets a model spend more tokens thinking. The survey also analyses OpenAI's o1 series and open-source attempts to reproduce it, other inference-time techniques, reasoning benchmarks and open problems. It reports no new experiments. Its value is a clear map of how search and learning work together to scale reasoning.

Key points

  • Sections 3–5 cover the three core components: automated data construction, RL for train-time scaling, and PRM-guided test-time scaling. Section 6 analyses o1, Section 7 covers other test-time techniques and Section 8 reviews benchmarks.
  • PRMs trained on search-generated reasoning trajectories give dense, step-level rewards. This creates a loop where search produces data and learning improves the model, in line with Richard Sutton's view that search and learning are the two methods that keep scaling.
  • OpenAI's o1 is presented as a milestone: it corresponds to level 2 ("reasoning AI") in OpenAI's five-level roadmap toward AGI. The open-source reproductions examined include OpenR, LLaMA-Berry and Journey Learning.
  • The authors argue that pretraining-scale gains are hitting a bottleneck, so post-training and test-time scaling may drive the next phase. They also argue that high-quality process-reward data now matters more than the amount of raw pretraining data.
  • Open problems include:
    • no theory yet of "slow thinking" (System 1 + System 2);
    • whether LLM agents follow similar scaling laws;
    • whether test-time scaling depends on strong instruction-following;
    • applying these methods to FunSearch-style tasks that are hard to solve but quick to verify, such as urban planning and logistics.
