Revisiting Self-Play Preference Optimization: On the Role of Prompt Difficulty
Paper · 2026 · Yao Xiao, Jung-jae Kim, Roy Ka-Wei Lee et al.
Summary
Self-play preference optimization aligns LLMs without human labels. A policy model samples several answers per prompt, a reward model scores them, and the top- and bottom-scored answers become a DPO training pair. Past work studied reward models and pair construction, but rarely asked which prompts belong in the training pool. This paper fills that gap. It defines a prompt's difficulty as the average reward over 10 sampled responses and ranks UltraFeedback prompts for Llama-3.1-Tulu-3-8B-SFT and Mistral-7B-Instruct-v0.2.
The hardest quartile of prompts produced clearly weaker DPO results than an equal number of easier prompts. Adding the hard prompts to the easier ones slightly hurt performance. Results improved steadily as the training prompts got easier, and the gap between hard and easy prompts shrank for stronger models. Of three fixes tested, two did not help: a curriculum from easy to hard, and better chosen responses for hard prompts. Simply pruning hard prompts did help. This gives practitioners a cheap filtering rule that saves compute and improves alignment.
Key points
- Setup:
- Rewards come from Skywork-Reward-Llama-3.1-8B-v0.2.
- Sampling uses vLLM with temperature 0.8.
- Prompts are UltraFeedback's 61K+ items.
- Ten samples per prompt already give a difficulty ranking close to the one from 20 samples.
- Validation: The quartile labels from the reward-based ranking agreed with GPT-4o difficulty judgments in over 85% of cases. Rankings also transferred partly across LLMs and across different reward models.
- AlpacaEval 2 LC win rate:
- Tulu trained on the hardest 25% scored 24.23, versus about 29.5 for an equal number of easier prompts (averaged over three runs).
- Mistral scored 25.96 versus 28.62.
- Best result: Training on only the easiest 30% of prompts gave peak performance on AlpacaEval 2 and Arena-Hard. Keeping more of the harder prompts beyond that point degraded results.
- Negative results: Neither curriculum learning nor improving chosen responses for hard prompts helped. The authors read this as hard-prompt value being limited by model capacity.
