MetaMetrics: Calibrating Metrics For Generation Tasks Using Human Preferences
Paper · 2024 · Genta Indra Winata, David Anugraha, Lucky Susanto et al.
Summary
Automatic metrics such as BLEU or BERTScore often disagree with human judgments. Each tends to capture only one quality dimension, such as coherence, consistency or relevance, and many come in poorly documented variants. The authors propose MetaMetrics, a supervised "meta-metric" that learns how to combine existing metrics so their joint score tracks human assessment scores as closely as possible. Individual metric outputs are first rescaled to a shared 0–1 range. A combination function is then calibrated against human ratings using one of two optimizers. Bayesian Optimization with a Gaussian Process is more interpretable and tends to select a sparse subset of metrics. Boosting with XGBoost captures more complex interactions. The approach is language- and modality-agnostic and works with or without references. It was tested on five tasks: machine translation, summarization, question answering, image captioning and reward modeling. In all of them, combining complementary metrics outperformed the individual metrics. MetaMetrics thus gives practitioners a cheap, extensible way to build evaluators tuned to specific human-preference aspects without exhaustive manual metric selection. The authors release it as an open-source library.
Key points
- The paper reports task-specific variants: MetaMetrics-MT, -SUM/-SUMM, -QA, -CAP and -RM, evaluated on data including SummEval, BLLM and THumB 1.0.
- Used as a reward model, it placed 5th of 155 on the overall RewardBench leaderboard, with the fewest parameters of the ranked entries. It was 3rd on the detailed leaderboard as of 16 Nov 2024.
- The GP variant selects metrics automatically. For reward modeling, its top 3 were GRM-Llama3-8B-rewardmodel-ft, Skywork-Reward-Llama-3.1-8B and internlm2-7b-reward. For summarization coherence, it favoured BERTScore (f1), BLEURT and ROUGE variants.
- Cost comparison on SummEval:
- G-Eval (GPT4) costs about US$82 and needs roughly 7,174 s on the test split.
- The full XGBoost MetaMetrics pipeline with LLM-based metrics totals about 13,916 s, counting train and test inference plus calibration.
- Running the component metrics in parallel could shorten this.
- Code is available at github.com/meta-metrics/metametrics.
