Towards Measuring and Modeling “Culture” in LLMs: A Survey

Paper · 2024 · Muhammad Farid Adilazuarda, Sagnik Mukherjee, Pradhyumna Lavania et al.

Summary

The survey asks how NLP research actually operationalizes "culture" when it evaluates cultural awareness, representation and bias in large language models. The authors gathered more than 90 papers from 2020–2024 through keyword searches of the ACL Anthology and Google Scholar, plus NeurIPS and the Web Conference. Work on speech, multimodal models and non-LLM systems was excluded. Each paper was hand-annotated for how it defines culture, how it probes the model, and which languages and cultures it covers. From these labels the authors built bottom-up taxonomies of cultural "proxies" and probing methods.

The central finding is that no surveyed paper explicitly defines culture. Instead, each dataset implicitly stands in for some facet of it, such as food, religion, or norms and values. Research concentrates on values and objectives, while many semantic domains and the notion of aboutness remain untouched. Probing techniques are also fragile.

This matters because it gives practitioners a vocabulary for stating which aspect of culture a benchmark measures. It also exposes a heavy English and Western bias in the evaluation resources.

Key points

  • The corpus contains about 90 papers (2020–2024), with a curated list released on GitHub as faridlazuarda/cultural-llm-papers.
  • Proxies of culture fall into 12 labels, grouped into demographic proxies (community-level groupings) and semantic proxies (content domains). These are cross-referenced with Hershcovich et al.'s (2022) axes: common ground, aboutness, and objectives and values.
  • The authors found no work on several semantic domains from Thompson et al. (2020), including quantity, time, kinship, and pronouns or function words. Aboutness has not been operationalized at all.
  • Black-box, prompt-based probing is sensitive to prompt wording and syntax. White-box methods such as gradient-based attribution (e.g., Wichers et al., 2024) have not yet been applied to culture.
  • The authors call for:
    • multilingual datasets built natively rather than translated, since most current datasets are English;
    • situated studies of real LLM applications;
    • engagement with anthropology (Geertz's thick description) and HCI.
