WebAgent-R1: Training Web Agents via End-to-End Multi-Turn Reinforcement Learning
Paper · 2025 · Zhepei Wei, Wenlin Yao, Yao Liu et al.
Summary
Reinforcement learning has improved LLMs mostly on single-turn problems like math. Web agents are harder to train this way: they must make long sequences of decisions on changing pages, and earlier RL approaches for this setting depended on offline or off-policy pipelines with extra components. WebAgent-R1 is a simpler end-to-end, on-policy framework. The agent first learns basic web operations through behavior cloning (SFT on expert trajectories). It then improves through live interaction with self-hosted WebArena sites, guided only by a binary success reward from rule-based checkers. The authors adapt GRPO to multi-turn episodes (M-GRPO). Two mechanisms keep training efficient: dynamic context compression, which limits memory use from long HTML histories, and parallel trajectory rollout. On WebArena-Lite, the method sets a new state of the art for its model sizes and beats proprietary systems such as OpenAI o3. This matters because it shows practical online RL for text-only web agents without reward models or replay buffers. Code is publicly released.
Key points
- On WebArena-Lite, success rates rise from 6.1% to 33.9% for Qwen-2.5-3B and from 8.5% to 44.8% for Llama-3.1-8B. Both results surpass WebRL, DigiRL, AWR, Filtered BC and OpenAI o3/o4-mini.
- The environment is WebArena (Reddit, GitLab, Shopping, CMS, Map), and observations are HTML only. Actions come from a fixed set (click, type, scroll, search, exit, etc.), and each output contains explicit thinking before the answer.
- Ablation variants WebAgent-R1-Zero (no behavior-cloning warm-up) and WebAgent-R1-CoT show that the BC warm-up is crucial. The analyses also give guidance on using long chain-of-thought reasoning.
- Thinking-based prompting helps, and allowing more interaction steps at test time consistently improves results.
- In an out-of-domain test on WebVoyager (25 tasks in each of 5 domains), average success is 32%, compared with 12% for SFT and 8.8% for prompting with Qwen2.5-3B.
