Targeted Exploration via Unified Entropy Control for Reinforcement Learning
Paper · 2026 · Chen Wang, Lai Wei, Yanzhi Zhang et al.
Summary
RL fine-tuning with GRPO, a critic-free method that normalizes rewards within rollout groups, tends to suffer from entropy collapse. Policy diversity drops early and the model settles on shallow reasoning. On harder multimodal tasks, training can also become unstable. Earlier fixes either widen clipping, as DAPO does, which adds variance, or add entropy bonuses, which bias the objective away from the task reward. The authors propose UEC-RL, which controls entropy in both directions. When none of a prompt's initial rollouts earn a reward, the prompt is treated as hard and resampled at a raised temperature t′. Only informative trajectories from this resampling are kept. A separate entropy-reducing replay stabilizer, sized by a budget s′, reinforces reliable trajectories and stops entropy from drifting upward. The method is tested on both LLM and VLM reasoning benchmarks and improves over RL baselines on Pass@1 and Pass@k. The largest gain is on Geometry3K. The work suggests that pairing exploration with stabilization matters more for scaling RL-based reasoning than one-sided entropy tricks.
Key points
- On Geometry3K, UEC-RL achieves a 37.9% relative accuracy improvement over GRPO.
- Retained samples fall into two groups:
- regular rollouts with nonzero advantage;
- high-temperature rollouts on hard prompts with non-negative advantage. Low-advantage exploratory samples are discarded as gradient noise.
- In the module ablation on Geometry3K, the full model scores 55.41:
- without the exploration module it drops to 50.41 (−5.00);
- without the stabilizer it drops to 49.58 (−5.93).
- In the hyperparameter sweep, the best result (55.41, average entropy 0.73) comes from t′=1.2 with s′=5120. A high t′ with a small budget pushes entropy to 4.29 and lowers accuracy to 50.25.
- The main limitation is sensitivity to (t′, s′), which needs per-task tuning to reach a moderate entropy of about 0.5. Code is available at github.com/597358816/UEC-RL.
