MDocRAG-RL: Empowering Multi-Modal Document RAG via Complex Visual Reasoning with Reinforcement Learning
Paper · 2026 · Zhongyu Wang
Summary
Visual RAG systems that answer questions over document collections struggle with complex visual reasoning. Generative MLLMs make poor retrieval embedders, and generators usually receive retrieved page images without any mechanism to inspect them closely. MDocRAG-RL tackles both issues.
For the dual-encoder MLLM retriever, the author adds a self-supervised pre-training stage on unlabeled document images with two objectives:
- contrastive matching between page images and their OCR-extracted text;
- a generative objective in which a masked attention scheme forces text reconstruction through a single aggregated visual embedding.
Supervised contrastive fine-tuning on real query–document pairs follows.
The generator works as an agent that can search, summarize, or crop and zoom into a bounding-box region of a retrieved page, which is then re-encoded at higher resolution. Training uses trajectories annotated jointly by a large VLM and expert models, followed by GRPO with rewards tailored to RAG.
The framework reports state-of-the-art results on several multi-modal document benchmarks. This shows that retrieval-aware embedding training and active visual inspection together substantially improve document-level reasoning.
Key points
- Retriever pre-training loss combines L_contrast (OCR text vs. image, in-batch negatives, cosine similarity with temperature) and L_generate (text prediction conditioned on the final-token visual embedding).
- The generator's action space has three types: search, summarization, and visual perception. Perception regions are marked with
<region>/</region>tokens, and coordinates are mapped back to the raw high-resolution image before cropping. - In ablations with Qwen2.5-VL-7B-Instruct across three benchmarks, retriever pre-training alone adds 3.9 points.
- The full system reaches 62.5%, which is 15.6 points above a vanilla RL baseline. Perception actions help most when paired with the pre-trained retriever and the RAG-specific rewards.
- The RAG-specific reward favors retrieving relevant documents early, which cuts the number of search iterations and partly offsets the extra latency. The author acknowledges remaining overhead and a limited action repertoire.
