Aligning Agents via Planning: A Benchmark for Trajectory-Level Reward Modeling

Paper · 2026 · Jiaxuan Wang, Yulan Hu, Wenjin Yang et al.

Summary

As LLMs turn into agents that call tools over many turns, reward models must judge entire interaction trajectories, not just single replies. Existing RM benchmarks mostly score short responses or isolated tool calls. To fill this gap, the authors build Plan-RewardBench, a pairwise preference benchmark of English, text-only agent trajectories. Each item pairs a validated good trajectory with a confusable worse one.

The tasks and MCP tool environments come from Toucan. They are re-run with Qwen-Agent and OpenAI-Agent runtimes using different base models, prompts and sampling settings. Hard negatives are then added through rule-based injections and minimal LLM edits, with length and format balanced so that only semantic flaws separate the pair. A multi-LLM judge panel, meta-review and human audit filter the labels.

The authors test discriminative RMs, generative RMs and general LLM judges. All of them struggle, and accuracy drops steeply as trajectories grow longer. This shows that agentic RL needs reward models trained specifically for trajectory-level judgment.

Key points

  • The benchmark has four scenario families: Safety Refusal, Tool-Irrelevance/Unavailability, Complex Planning (multi- and single-turn, Easy/Hard) and Robust Error Recovery. Results are reported as macro-averaged pairwise accuracy over 7 columns.
  • The strongest general LLM judges (e.g., Qwen-Plus, DeepSeek-V3.2-Exp) reach only about 70% average accuracy. Llama-3.2-8B-Instruct scores about 51%, close to chance.
  • Pairwise LLM judges fall apart on inputs longer than 32k tokens. Pointwise RMs such as Skywork-Reward-V2 and InternLM2-7B-Reward lose accuracy more gradually as length grows.
  • The diagnostics reveal two typical biases. Under an "effort bias", judges reward needless tool calls. Under superficial recovery, they reward blind retries as if they were real fixes.
  • The data is released on Hugging Face under CC BY 4.0, and the code is on GitHub under Apache 2.0. No tool re-execution is needed to use it.
