Skywork R1V2: Multimodal Hybrid Reinforcement Learning for Reasoning

Paper · 2025 · Peiyu Wang, Yichen Wei, Yi Peng et al.

Summary

"Slow-thinking" vision-language models tend to improve on math and science benchmarks, but they often lose accuracy on everyday perception tasks and hallucinate more about image content. Skywork R1V2 addresses this trade-off without teacher distillation or a supervised fine-tuning stage. The architecture connects a frozen InternViT-6B vision encoder to the QwQ-32B reasoning LLM through a lightweight MLP adapter.

Training is a hybrid of two methods:

  • Mixed Preference Optimization (MPO): guided by the Skywork-VL Reward model and rule-based checks, it reduces repetitive or excessive chains of thought.
  • GRPO: uses both rule-based and model-based rewards.

GRPO loses its learning signal when all sampled answers in a group become uniformly correct or wrong. To counter this, the authors add a Selective Sample Buffer (SSB) that stores and replays samples with non-zero advantage. They also find that overly strong reward signals increase visual hallucination, so they keep reward thresholds calibrated during training.

The released 38B model outperforms other open-source systems on several benchmarks and narrows the gap to Gemini 2.5 and OpenAI-o4-mini. It provides an open recipe for multimodal reasoning.

Key points

  • Reported scores: 62.6 on OlympiadBench, 78.9 on AIME2024, 63.6 on LiveCodeBench and 73.6 on MMMU. Weights are published as Skywork/Skywork-R1V2-38B on Hugging Face.
  • Strategy comparison on hallucination rate and AIME 2024:
    • SFT: 12.1% hallucination, 70.0 on AIME 2024.
    • MPO alone: 8.7% hallucination, 79.0 on AIME 2024.
    • MPO+GRPO: 9.1% hallucination, 78.9 on AIME 2024, plus the best OlympiadBench (62.6) and MathVista (74.0) scores.
  • Adapter-only training outperformed both LLM+adapter and adapter+vision-encoder setups (MMMU 73.6, MathVista 74.0, OlympiadBench 62.6 vs. roughly 72 and 60). This suggests that cross-modal alignment, not visual encoding, is the main bottleneck.
  • The MPO loss sums three terms: a DPO preference term, a BCO absolute-quality term and an NLL generation term.
  • MPO threshold matters:
    • A threshold of 15 gave stable results (MathVista 73.3, MMMU 72.6 after 420 iterations).
    • A threshold of 10 peaked at MMMU 73.6 and then fell to 68.9 by iteration 2420, a sign of reward hacking.
