Language Adaptation of Large Language Models: An Empirical Study on LLaMA2
Paper · 2025 · Shumin Wang, Yuexiang Xie, Bolin Ding et al.
Summary
Most large language models learn mainly from English text and handle other languages less well. Building a balanced multilingual model from scratch is too costly for most groups, so adapting an existing model is the practical alternative. Methods for transferring older models such as BERT across languages may not carry over to modern causal LLMs. This paper runs a controlled empirical study of the full adaptation pipeline on LLaMA2. The pipeline has three stages: vocabulary expansion, continued pre-training (CPT) and instruction fine-tuning (IFT). The main target is English-to-Chinese, with extra checks on Italian, Thai, Portuguese, German, French and Japanese.
The authors vary several settings:
- how many tokens are added and how their embeddings are initialized;
- whether CPT data includes high-quality English text and translation text;
- how CPT and IFT interact, and how instruction data is mixed.
They find that a moderate vocabulary expansion helps. CPT and IFT work best together, and translation data pays off mainly after CPT. The result is a practical guide for adapting English-centric LLMs to other languages, including Ukrainian.
Key points
- LLaMA2's training corpus is 89.7% English, with Chinese and French each under 0.2%. Its 32,000-token vocabulary has only about 300 Chinese characters, so an unknown character is split into 3–4 low-meaning byte-level units.
- Adding roughly 2,000 target-language tokens works well for LLaMA2. Much larger expansions can hurt performance unless the model gets enough continued pre-training. Embedding initialization options compared include random, bilingual or overlapping-token mapping, and averaging the byte-level token embeddings.
- High-quality English (source-language) text is important in CPT data. Translation text gives extra gains, especially when target-language data is scarce.
- In IFT, mixing target-language and English instructions at about 1:1 to 1:3 gives the best results. Models that went through CPT benefit more from the English instructions.
- The authors added 0.1B tokens of English–Chinese translation instructions generated with GPT-3.5-turbo:
- after CPT, C-Eval rose from 34.1 to 34.8;
- without CPT, it slightly dropped, from 31.2 to 30.9.
