Augmented SBERT: Data Augmentation Method for Improving Bi-Encoders for Pairwise Sentence Scoring Tasks
Summary
Cross-encoders such as BERT read both sentences of a pair jointly and score pairs accurately. They are too slow for large-scale clustering or retrieval and produce no indexable embeddings. Bi-encoders such as SBERT embed each sentence separately and are fast, but they trail cross-encoders, most of all when labeled data is scarce. The authors propose Augmented SBERT (AugSBERT). A cross-encoder fine-tuned on the gold data assigns soft labels to new sentence pairs, forming a "silver" set. The bi-encoder is then trained on gold plus silver data.
The paper's central claim is that the way pairs are chosen for labeling decides whether the method works. The authors compare random sampling, KDE-based distribution matching, BM25 retrieval, semantic search with a preliminary SBERT, and BM25 combined with semantic search. They test four in-domain tasks and a cross-domain transfer setting. AugSBERT raises bi-encoder scores by up to 6 points in-domain and up to 37 points under domain adaptation. This gives practitioners a cheap way to get stronger fast encoders without new manual annotation.
Key points
- In-domain evaluation spans four tasks: argument similarity (BWS corpus, cross-topic and in-topic), semantic textual similarity (Spanish-STS), duplicate question detection (Quora-QP) and news paraphrase identification (MRPC). Regression tasks use Spearman ρ and classification tasks use F1.
- Random pairing produces mostly negative pairs and can hurt results. On Spanish-STS development data, AugSBERT-R.S. scores 75.90 against 82.30 for plain SBERT. In contrast, AugSBERT-BM25+S.S. reaches 85.98.
- BM25 sampling runs on ElasticSearch indices and keeps the top-k retrieved neighbours. KDE sampling matches the silver label distribution to the gold one, but it wastes computation on discarded pairs.
- Training uses seed optimization: 5 random seeds, early stopping at 20% of training steps, and the best model selected on the development set.
- Domain adaptation experiments transfer between AskUbuntu, Quora, Sprint and SuperUser, measured by AUC(0.05), with Bi-LSTM baselines adapted from Shah et al. (2018). Code is released at www.sbert.net.
