GPL: Generative Pseudo Labeling for Unsupervised Domain Adaptation of Dense Retrieval
Summary
Dense retrievers trained on large labeled collections such as MS MARCO lose much of their quality on specialized domains, where labeled data is rarely available. GPL (Generative Pseudo Labeling) adapts such retrievers using only an unlabeled set of passages from the target domain. A T5 model trained on MS MARCO creates synthetic queries for each passage. An existing dense retriever then fetches hard negatives for each query. A cross-encoder scores every query–passage pair, and the dense model learns from the score margins via MarginMSE loss. These graded labels, unlike the binary ones in QGen, help filter out poor synthetic queries and noisy negatives. On six domain-specific BeIR datasets, GPL beats a strong MS MARCO model applied zero-shot and also improves on QGen. The authors also compare six pre-training methods for domain adaptation, and TSDAE works best, particularly when combined with GPL. The method matters because it brings dense retrieval to domains without annotated training data, and code and models are released.
Key points
- GPL gains up to 9.3 nDCG@10 over the zero-shot MS MARCO baseline and up to 4.5 points over QGen on six BeIR datasets.
- The pipeline mines 50 negatives per generated query with a dense retriever, which worked slightly better than BM25, and trains with MarginMSE loss on cross-encoder margins.
- Of six pre-training methods, only three helped. TSDAE outperformed MLM by 2.5 nDCG@10 on average, and adding it to GPL gave another 1.4 points on average.
- The best number of queries per passage depends on corpus size: about 50 for SciFact (5.2K passages), 5 for FiQA (57.6K) and 1 for Robust04 (528.2K).
- GPL is robust to noisy query generation, staying about 3 points above zero-shot even at temperature 10. Its results vary with the starting checkpoint by 0.3 points, compared with 1.9 for QGen.
- Code and models are available at github.com/UKPLab/gpl.
