KG-MuLQA: A Framework for KG-based Multi-Level QA Extraction and Long-Context LLM Evaluation

Paper · 2026 · Nikita Tatarinov, Vidhyakshaya Kannan, Haricharana Srinivasa et al.

Summary

Long-context LLMs can now take in entire documents, but existing benchmarks rarely define question difficulty in a principled, controllable way, and their questions are usually written by hand or by LLMs. The authors propose KG-MuLQA, a framework that converts annotated documents into knowledge graphs and generates QA pairs from them deterministically. Difficulty varies along three axes: the number of retrieval hops, the use of set operations (such as "X but not Y"), and whether one or several answers are expected. Applied to 170 SEC credit agreements, the framework yields KG-MuLQA-D, a dataset of 20,139 QA pairs grouped into five complexity levels. The authors test 16 proprietary and open-weight LLMs with four metrics and validate the metrics through human evaluation. Even strong models sometimes miss basic facts, and performance drops markedly on multi-hop and set-based questions. Typical errors include "Not Found" abstentions, semantic misreadings and missed implicit relations. Human performance stays stable across levels, which suggests the difficulty is genuine rather than an artifact of question construction. The method offers an interpretable, scalable way to diagnose long-document reasoning and transfers to other domains.

Key points

  • Source corpus: 17 credit agreements per year from SEC EDGAR, covering 2013–2022 (170 documents in total). Documents average about 83.7K tokens, with a maximum of about 233K.
  • Annotation: the schema uses seven label types, which fall into three groups: organization labels (the organization's name, its role, and its sub-role), person labels (the individual's name and position), and location labels (the location itself and its type). Each document was annotated by three annotators, with inter-annotator agreement reaching a Cohen's Kappa of 80.76%.
  • Graph construction and question generation: the knowledge graphs are built in RDF, stored as Turtle (.ttl) files and queried with SPARQL. Questions are generated from 69 templates that start with 1-hop, single-answer questions and grow in hops, set operations and plurality.
  • Evaluation setup: models are scored with F1, edit distance, cosine similarity and an LLM-as-judge score. Additional experiments with Gemini-2.0-Flash show the following:
    • Running without chunking mainly reduces abstentions rather than improving reasoning.
    • Asking questions one at a time instead of in batches of 50 helps modestly on easy and medium questions.
  • Released resources and limitations:
    • A portion of the dataset is on Hugging Face (gtfintechlab/KG-MuLQA-D), and the inference and benchmarking code is on GitHub (gtfintechlab/KG-MuLQA).
    • A case study on medical documents illustrates that the framework generalizes beyond credit agreements.
    • The benchmark does not cover temporal or numerical reasoning.
