Personalized Pieces: Efficient Personalized Large Language Models through Collaborative Efforts
Paper · 2024 · Zhaoxuan Tan, Zheyuan Liu and Meng Jiang
Summary
Tailoring large language models to individual users often relies on giving each person their own parameter-efficient fine-tuning (PEFT) module, as in OPPU. That approach works well, but the training and storage costs grow linearly with the number of users, and the personal modules cannot help anyone else. The authors propose PER-PCS (Personalized Pieces), a collaborative alternative. A small set of representative "sharer" users is chosen by clustering user-history embeddings. Each sharer's LoRA is trained and then split into per-layer pieces, and each piece receives a lightweight gate. For a new target user, the framework runs that user's history through the model and scores the pooled pieces against the hidden activations, layer by layer. It then picks and weights pieces to build a personal PEFT without any additional training. Across six LaMP tasks, PER-PCS beats non-personalized and PEFT-retrieval baselines and comes close to OPPU at a fraction of the cost. This suggests that efficient, privacy-conscious personalization can draw on shared community resources.
Key points
- Sharer selection: user histories are encoded with DeBERTa-v3-Large and grouped by k-means (K=50 by default). The most active user in each cluster becomes a sharer.
- A "piece" is one LoRA low-rank pair (B, A) at a single layer. Gates are trained post hoc while all other parameters stay frozen.
- Building a target user's PEFT requires no training. The system only stores which sharer pieces were chosen and their composition weights.
- Compared with OPPU, PER-PCS needs about 38× less storage and about 7× less computation. As a reference point, OPPU takes roughly 20 minutes on an RTX A6000 and about 17 MB per user for product rating prediction.
- Performance holds up across different numbers of sharers and selection strategies, even when sharers release only part of their pieces. The authors note two limitations: the experiments focus on LoRA, and each user is evaluated on a single task. Code is available at github.com/TamSiuhin/Per-Pcs.
