Linear Attention Sequence Parallelism

Paper · 2024 · Weigao Sun, Zhen Qin, Dong Li et al.

Summary

Sequence parallelism (SP) lets a sequence too long for one GPU's memory be split across several devices. Existing SP schemes, such as those in Megatron-LM and DeepSpeed-Ulysses, were built for Softmax attention. They ignore the fact that linear attention can compute K⊤V first, and they partition attention heads, which caps the degree of parallelism. The authors propose LASP (Linear Attention Sequence Parallelism). Each device processes one chunk of the sequence. Work inside a chunk uses the ordinary left product, while dependencies between chunks are handled with the right-product form. Devices form a ring and pass a single compact KV state forward, then its gradient dKV backward. Because this state's size does not depend on sequence length, communication stays cheap. The GPU implementation adds kernel fusion and KV state caching, and it works with batch-level data-parallel backends. In tests with linear-attention models (TNL) on contexts from 2K to 4096K tokens, LASP trained sequences 8× longer than prior SP methods while running faster. This matters for long-context linear and hybrid models such as Minimax-01.

Key points

  • Communication per step is one intermediate KV state, not full key and value blocks, so its volume is independent of sequence length.
  • LASP does not partition attention heads, so it supports multi-head, multi-query and grouped-query attention.
  • It is compatible with PyTorch/Legacy DDP, FSDP and ZeRO-series optimizers, which the authors call data-sequence hybrid parallelism.
  • On 128 GPUs, LASP reaches a 4096K sequence length, 8× beyond existing SP methods.
  • In an ablation with TNL-1B on one node of 8× A100 80G GPUs, the maximum sequence length grows as follows:
    • DDP: from 12K alone to 496K with activation checkpointing plus LASP.
    • FSDP: from 16K alone to 768K with activation checkpointing plus LASP.
  • Code is available at github.com/OpenNLPLab/LASP.
