Hierarchically Gated Recurrent Neural Network for Sequence Modeling

Paper · 2023 · Zhen Qin, Songlin Yang and Yiran Zhong

Summary

Transformers scale quadratically with sequence length. RNNs run in linear time but are traditionally slow to train and weak at capturing distant context. The authors propose HGRN (Hierarchically Gated Recurrent Neural Network), a stack of layers that pairs an HGRU token mixer with a GLU channel mixer. HGRU uses element-wise linear recurrence in the complex domain, so training can be parallelized with scans. Its key addition is a data-dependent forget gate. A learnable lower bound is added to this gate, and the bound grows monotonically with depth. As a result, shallow layers forget quickly and focus on local patterns, while deep layers keep information much longer. The model is evaluated on autoregressive language modeling, image classification and the long-range arena (LRA). Ablations show that the input-dependent forget gate and the increasing lower bound are both important, and the bound is essential for long sequences. The work matters because it brings recurrent models closer to Transformers in quality while keeping inference cheap. Code is released under OpenNLPLab/HGRN.

Key points

  • In the language modeling ablations, full HGRN reaches 24.14 perplexity, compared with these variants:
    • 24.71 without the lower bound
    • 24.63 with a decreasing bound
    • 27.70 with only a static (input-independent) bound
  • On LRA, HGRN averages 86.91, including 97.50 on Path-X. Without the lower bound the average falls to roughly 51.5, and at least one task does not converge.
  • Removing the complex-valued phase raises perplexity to 25.34. Making θ input-dependent raises it further, to 28.74.
  • Median forget-gate values climb from about 0.47 in layer 1 to 0.98 in layer 6, which confirms the intended hierarchy.
  • The paper was published at NeurIPS 2023. The authors acknowledge that their experiments are smaller in scale than those of large production models.
