Automatic Prompt Augmentation and Selection with Chain-of-Thought from Labeled Data
Paper · 2023 · Kashun Shum, Shizhe Diao and Tong Zhang
Summary
Chain-of-thought (CoT) prompting helps large language models reason, but it usually depends on hand-written rationale exemplars. Writing them is costly, and results vary with the exemplars' order, complexity (number of reasoning hops), diversity and writing style. The authors propose Automate-CoT for settings where labeled question–answer pairs exist but rationales do not. The pipeline has three steps:
- Augment: the LLM writes a rationale chain for each training question, either from a few seed exemplars or zero-shot.
- Prune: chains whose final answer disagrees with the gold label are discarded.
- Select: a small set of exemplars (4–8) is picked from the remaining pool by optimizing categorical latent variables with a variance-reduced policy gradient estimator. This needs no access to model gradients, so it fits API-only models such as GPT-3.
Across arithmetic, commonsense, symbolic and non-reasoning benchmarks, the method beats manual and automatic exemplar baselines. This matters because CoT can be adapted to new tasks quickly, without human prompt engineering, and the method is less fragile to exemplar choice.
Key points
- Reported average gains: +2.7% arithmetic, +3.4% commonsense, +3.2% symbolic, +2.5% non-reasoning tasks.
- Motivation experiments showed order sensitivity on GSM8K. Across 10 random shuffles of the Manual-CoT exemplars, accuracy fell as low as 59.8%, against a reported average of 63.1%. Prior work also showed that annotator style alone can shift symbolic-task accuracy by up to 28.2%.
- Human-written CoT tends to use ≤3 hops, and all-complex (9-hop) Complex-CoT hurts on simple questions. Mixing complexity levels gave a better complexity–diversity trade-off.
- Baselines include Manual-CoT, self-consistency, Auto-CoT, BM25 retrieval and PromptPG. Selection is constrained by GPT-3's 2,048-token context.
- Code is released at github.com/SHUMKASHUN/Automate-CoT. The listed limitations are no comparison with fine-tuning and no formal definition of good versus bad rationale style.
