Suppressing Final Layer Hidden State Jumps in Transformer Pretraining
Paper · 2026 · Keigo Shibata, Kazuki Yano, Ryosuke Takahashi et al.
Summary
Many Transformer language models change their hidden states very little in the middle layers, then show a sharp rise in angular distance between input and output vectors at or near the last layer. The authors call this a "jump" and argue it means the network leans too heavily on its final layer while leaving middle layers underused. They define a jump-rate metric and show that the pattern is common across open-weight models and becomes stronger as pre-training continues. To counter it, they add a regularizer called JREG to the usual cross-entropy objective. JREG penalizes per-layer hidden-state displacement, with softmax weights that place most of the penalty on the final layers. They pre-train Llama-based models of 170M, 1B and 3.4B parameters from scratch, with and without JREG. With JREG, the final-layer jump disappears, middle layers contribute more, and downstream accuracy improves. The model architecture is unchanged. The work suggests that a simple training-time penalty can recover unused capacity in deep language models.
Key points
- Training setup: models were trained from scratch on 100B tokens from Fineweb-edu for 200,000 steps.
- The 170M model has 12 layers with dimension 768.
- The 1B model has 16 layers with dimension 2048.
- A 3.4B model was also trained.
- The regularizer weight λ was fixed at 1.0, and the layer-weighting hyperparameter α was varied, mainly 1.0 and 3.0.
- Evaluation: benchmarks included LAMBADA top-1 accuracy, BoolQ, ARC-e, HellaSwag, PIQA, RACE, Social IQA, SciQ and SWAG.
- JREG raised average scores over the baseline at every size.
- For the 1B model, α = 1.0 worked best.
- Jump rate at the final layer (ζ_L): for the 1B model, this fell from 6.42 in the baseline to 0.0 with JREG.
- After supervised fine-tuning of the 3.4B models:
- JREG beat the baseline on Vicuna, WizardLM and MT Bench, with averages of 4.67 versus 4.28.
- The improvement was reported as statistically significant.
- The baseline's jump persisted after fine-tuning (ζ_L = 5.14), while JREG kept the jump rate at 0.0 across the last three layers.
- Layer-wise analysis on the 3.4B model: JREG shrinks displacement in the final layers and enlarges it in most earlier and middle layers. This is consistent with work being spread more evenly across the network.
