Label Verbalization and Entailment for Effective Zero and Few-Shot Relation Extraction
Paper · 2021 · Oscar Sainz, Oier Lopez de Lacalle, Gorka Labaka et al.
Summary
Relation extraction (RE) usually needs many annotated examples, which are rarely available in real applications. Sainz et al. recast RE as textual entailment. The sentence containing the two entities acts as the premise. Each candidate relation is turned into one or more short hand-written hypothesis templates, such as "{subj} was born on {obj}", with no more than 15 minutes of effort per relation. Entity-type constraints filter out relations whose argument types do not fit, which resolves ambiguous templates. An off-the-shelf NLI model scores each hypothesis, and the relation with the highest entailment probability wins. NO-RELATION is predicted either through a dedicated template or when no score passes a threshold. The same NLI model can also be fine-tuned on a few labelled examples. On TACRED, the approach far outperforms supervised baselines in zero- and few-shot settings. With larger NLI backbones (DeBERTa) and full training data, it reaches the best TACRED results reported so far. This shows that cheap label verbalizations can replace much of the costly annotation.
Key points
- Low-data results on TACRED: about 63% F1 zero-shot and 69% F1 with 16 examples per relation. The few-shot score beats the best supervised system under the same conditions by 17 points and is only about 4 points below the state of the art, which uses roughly 20 times more training data.
- Scaling with model size: larger entailment models raise zero-shot performance by up to 12 points. NLI DeBERTa, when fully trained, sets a new best result on TACRED.
- NO-RELATION detection: two strategies are compared, a dedicated "not related" template and a probability threshold. The threshold defaults to 0.5 and can be tuned on a small development set.
- Error analysis (NLI DeBERTa): in zero-shot mode, distinguishing among positive relations reaches 85.6 F1, versus 92.2 when fully trained. Positive-vs-no-relation detection lags much further behind (59.5 vs 77.8). Most remaining confusions involve overlapping relations, such as ORG:MEMBER_OF vs ORG:PARENTS.
- Data augmentation and code: silver labels produced by the NLI system can train a conventional RE model with comparable quality. Code and data splits are released in the Ask2Transformers GitHub repository.
