Attention Sinks in Diffusion Language Models

Paper · 2026 · Maximo Eduardo Rulli, Simone Petruzzi, Edoardo Michielon et al.

Summary

Attention sinks are a small set of tokens that receive a disproportionate share of attention. They are well documented in autoregressive models (ARMs), but no one had examined them in masked Diffusion Language Models (DLMs), which generate text by repeatedly unmasking tokens under bidirectional attention. The authors study this empirically on three open instruct DLMs:

  • Dream-7B, initialized from an ARM and trained to predict the shifted next token.
  • LLaDA-8B, trained from scratch and decoded semi-autoregressively in blocks.
  • MMaDA-8B, a multimodal model built from LLaDA-8B.

They track how much cumulative attention each token receives across denoising steps. They also introduce a metric that locates sinks and measures their intensity, and they test model behaviour when sinks are masked out. All three models develop sinks. Unlike the fixed anchors seen in ARMs, these sinks frequently move or disappear during generation, and they often sit on whitespace, mask or formatting tokens. Removing them lowers DLM performance only modestly, whereas ARMs collapse under the same intervention. The findings expose structural differences relevant to interpretability and efficient inference.

Key points

  • The study covers three masked DLMs (Dream-7B, LLaDA-8B, MMaDA-8B) and reports the first analysis of attention sinks in this model family. Code is available at github.com/Maximo-Rulli/dlms-sinks.
  • Sink positions are dynamic: they shift across denoising steps as tokens get unmasked. In ARMs, by contrast, sinks are usually a single static token near the start of the sequence.
  • The most frequent sink tokens are the whitespace token Ċ and the mask token:
    • LLaDA: Ċ 0.368, <|mdm_mask|> 0.366
    • Dream: <|mask|> 0.321
    • MMaDA: Ċ 0.180
    • These frequencies come from 30 generations of length 128, with 128 steps and block size 32.
  • The authors attribute DLMs' robustness to sink masking to two factors: bidirectional context, and confidence-based unmasking, which can postpone tokens that depend on a removed sink.
  • The study has three stated limitations: it is purely empirical, it uses only instruct models (no base versions), and it does not explore how training choices shape sinks.
