Instructions are all you need: Self-supervised Reinforcement Learning for Instruction Following
Paper · 2026 · Qingyu Ren, Qianyu He, Powei Chang et al.
Summary
Language models often fail to satisfy instructions that contain several constraints at once. Existing RL methods for this problem depend on stronger models or human annotators for rewards, and multi-constraint tasks give sparse rewards. The authors propose a self-supervised RL framework in which reward signals come from the instructions themselves. Each multi-constraint instruction is split into an incremental curriculum: level k keeps only the first k constraints. A response written for level k is treated as satisfying constraint k, and the response for level k−1 is treated as violating it. These pseudo-labelled pairs train a lightweight binary classifier that judges one constraint at a time, which is used for soft constraints. Hard constraints are checked by code. The policy is then optimized with GRPO using the combined rewards. GPT-4o is used only to write the constraint-augmented instructions, not to produce outputs or labels. The method improves results on 3 in-domain and 5 out-of-domain benchmarks, including agentic and multi-turn instruction following, while general abilities are preserved. This makes instruction-following training cheaper and less dependent on proprietary models.
Key points
- Training data:
- 3,000 seed instructions were enriched by GPT-4o with constraints drawn from 23 hard types (e.g., JSON format) and 25 soft types (e.g., style, role).
- 4,501 math problems from the DeepScaleR-Preview-Dataset and 1,929 SciKnowEval science questions were added to preserve general skills.
- Curriculum: the curriculum has five levels, L1–L5, with about 2.6–2.8k instructions per level. The total number of constraints rises from 2,806 at L1 to 13,095 at L5.
- Label quality: the pseudo-labels agree well with human annotation, with a Kendall Tau of 94.0 and position consistency of 97.0.
- Training dynamics: Qwen2.5-7B-Instruct and R1-Distill-Qwen-7B were trained. For both, the reward climbs from about 0.55 to about 0.7 by step 200.
- Behaviour and release: training makes the model's reasoning and its final outputs more consistent, as assessed on IFEval and CFBench. Code is released at github.com/Rainier-rq/verl-if, and data is on Hugging Face.
