VerIF: Verification Engineering for Reinforcement Learning in Instruction Following

Paper · 2025 · Hao Peng, Yunjia Qi, Xiaozhi Wang et al.

Summary

Reinforcement learning with verifiable rewards (RLVR) works well in math and code, but how to verify instruction following has received little study. The only prior attempt, TULU 3, gave modest gains and checked only rule-checkable constraints. The authors propose VerIF, a hybrid reward. Hard constraints, such as length, keywords and format, are checked by automatically generated Python code. Soft constraints, such as style and content, are judged by a reasoning LLM (QwQ-32B). The final reward averages the binary results from both checks.

To train with this reward, they built VerInstruct, about 22,000 English instructions. Constraints were added through constraint back-translation, and Qwen2.5-72B-Instruct wrote the checking code. GRPO training on TULU 3 SFT and DeepSeek-R1-Distill-Qwen-7B produced clear gains on IFEval, Multi-IF, SysBench, FollowBench and CFBench. The models also handled unseen constraints and kept their general and math skills. This suggests VerIF can be added as an extra RL stage to existing pipelines. Data, code and models are publicly released.

Key points

  • In a pilot on IFBench, the combined code+LLM verifier (QwQ-32B) scored 58.1% overall. Code-only scored 48.6%, LLM-only QwQ 37.4%, and LLM-only Qwen2.5-72B-Instruct 28.6%. LLMs did especially poorly on length and keyword checks.
  • On IFEval, pass@64 exceeded pass@1 by more than 20 points for both SFT models. The authors take this as evidence of untapped room for RL.
  • The model trained from TULU 3 SFT reached state of the art among similarly sized models and outperformed the original TULU 3. Ablations using only code checks or only LLM checks both caused notable drops.
  • General abilities were checked on AlpacaEval 2.0, MT-Bench, GSM8K, Omni-MATH, MMLU-Pro, DROP and BBH, and were preserved.
  • IF-Verifier-7B is a distilled soft-constraint judge trained on about 130k instructions from WildChat and Infinity Instruct. It matches QwQ-32B as a reward source while running on a single H800 GPU, taking about 120 s per batch.
