PanGu-{\Sigma}: Towards Trillion Parameter Language Model with Sparse Heterogeneous Computing

Paper · 2023 · Xiaozhe Ren, Pingyi Zhou, Xinfan Meng et al.

Summary

PanGu-Σ is a Huawei technical report on training a trillion-parameter language model on limited hardware. Sparse Mixture-of-Experts models usually suffer from unbalanced expert load and costly all-to-all communication, and offloading work to the host CPU tends to reduce throughput. The authors start from PanGu-α weights and build a 1.085T-parameter decoder. Its lower layers stay dense and are shared by all inputs. The upper layers use Random Routed Experts (RRE), which route each token in two steps. First, the token's domain selects a group of experts. Then a fixed, randomly initialized map assigns the token to one expert in that group, with no learned gate. This design lets users extract a smaller domain-specific sub-model for deployment and add new domains without disturbing existing experts. On the systems side, Expert Computation and Storage Separation (ECSS) reduces host–device data transfers and optimizer overhead. The model was trained with MindSpore on 512 Ascend 910 chips using 329B tokens. The work shows that trillion-scale sparse models can be trained efficiently and still be deployed in practice.

Key points

  • Training took about 100 days and covered more than 40 natural and programming languages. It reached 69,905 tokens/s, which is 6.3× the throughput of a comparable standard MoE setup.
  • RRE builds on the Hash Layers idea. Domain-specific token embeddings and per-layer random routing maps help keep the computation balanced across experts.
  • In zero-shot evaluation on 16 Chinese tasks spanning six categories, the Chinese sub-model beat PanGu-α (13B) and ERNIE 3.0 Titan (260B). It used no instruction tuning or multitask fine-tuning.
  • On MBPP code generation, a 38B sub-model scored 26.8 pass@1, ahead of PanGu-Coder's 25.4, despite seeing less Python data.
  • On SuperGLUE (zero-shot), the 38B English sub-model was trained on 112B English tokens. It averaged 64.62, compared with 57.2 for GPT-3 13B.
