SciPedia: Unlocking the Value of Scientific Data for Pre-training
Paper · 2026 · Yiwei Qin, Zhen Huang, Tiantian Mi et al.
Summary
Academic books and research papers are among the richest sources of high-quality text. Open LLM pre-training seldom uses them because public scientific corpora are mostly web-filtered or narrow, and much of the literature is locked inside PDFs. The authors collect books and papers from original sources and process them with OCR parsing, deduplication and rule-based filtering. Pre-training on this raw material gives almost no benefit, a problem they call the Learnability Gap. To fix it, they add a multi-stage pipeline of content cleaning and pedagogical augmentation, which produces SciPedia, a 900B-token scientific corpus. They test it in a controlled setting. Transparent 3B and 7B base models, trained from scratch, receive 600B tokens of continued pre-training (CPT) and are scored on a new benchmark, SciPedia-Eval. SciPedia outperforms CPT on general-purpose data, with the largest gains on in-domain science tasks. The work turns an underused data source into an openly released pre-training resource and gives practical advice on data mixing and model configuration.
Key points
- Directly pre-training on raw OCR-extracted scientific text yields negligible improvement (the Learnability Gap). Cleaning plus pedagogical rewriting of the content is what makes the data useful.
- SciPedia contains about 900B tokens built from academic books and research papers. It is released as GAIR/Darwin-Science on Hugging Face, with code, models and benchmarks at GAIR-NLP/Data-Darwinism on GitHub.
- The verification setup runs 600B tokens of CPT on 3B and 7B base models trained from scratch and evaluates them with the new SciPedia-Eval benchmark.
- Compared with a general-data CPT baseline, average scores rise by +2.12 (3B) and +2.95 (7B), and in-domain scores rise by +5.60 and +8.40.
- The controlled experiments also produce empirical guidelines on data composition and model configuration.
