Grounding Multilingual Multimodal LLMs With Cultural Knowledge

Paper · 2025 · Jean De Dieu Nyandwi, Yueqi Song, Simran Khanuja et al.

Summary

Multimodal LLMs tend to fail on culturally specific, long-tail entities and perform worse in low-resource languages, mainly because their training data is dominated by English and Western content. Translating English data does not fix this. The authors propose a data-centric fix that builds culturally grounded training data from Wikidata. Their pipeline has five steps:

  • select entities tied to 42 countries through 76 culturally meaningful properties;
  • gather images from Wikidata and Wikimedia Commons;
  • fill language-specific templates to produce factual VQA pairs in 39 languages;
  • have open LLMs rewrite the pairs for fluency and cultural context, without revealing the entity's name;
  • use a VLM to remove mismatched or irrelevant triplets.

The result is CulturalGround. They train CulturalPangea on it, mixing in standard multilingual instruction data so general skills are retained. The model sets new open-model state of the art on culture-oriented multilingual multimodal benchmarks without losing ground on mainstream vision–language tasks. This makes structured knowledge graphs a scalable source of culturally inclusive multimodal data, and Ukrainian is among the covered languages.

Key points

  • CulturalGround contains 22M VQA samples, of which 14M remain after VLM filtering. It covers about 3M unique entities, 2.8M images, 39 languages and 42 countries.
  • QA pairs are first generated from 76 property templates, such as place of birth, occupation and religion, plus one entity-identification question per entity. Qwen2.5-72B and Gemma3-27B then refine them.
  • CulturalPangea beats prior open MLLMs by about +5.0 points on average across cultural benchmarks, including CVQA, ALM-Bench, XM100 and MERLIN. Checkpoint merging (TIES) reaches roughly 60.2% average accuracy, compared with 55.2% for the Pangea-7B baseline.
  • The authors acknowledge several limitations:
    • entities, images and samples are skewed toward high-GDP countries and high-resource languages;
    • only factual, entity-centric knowledge is covered, so social norms, dialects and implicit values are absent.
