JanusFlow: Harmonizing Autoregression and Rectified Flow for Unified Multimodal Understanding and Generation

Paper · 2024 · Yiyang Ma, Xingchao Liu, Xiaokang Chen et al.

Summary

Unified vision-language systems usually either attach an external text-to-image generator to an LLM or turn images into discrete vector-quantized tokens. The first adds architectural complexity, and the second is limited by tokenizer quality. JanusFlow, from DeepSeek-AI and collaborators, shows that rectified flow can be trained directly inside an autoregressive LLM. Only a small generation encoder and decoder are needed, operating in the SDXL-VAE latent space. Text answers are produced by next-token prediction. Images are produced by having the LLM predict velocity vectors, which an Euler solver integrates from Gaussian noise, with classifier-free guidance applied. Two design choices improve quality. Understanding and generation use separate visual encoders, which avoids interference between the tasks. The model is also trained with a representation alignment regularizer that ties the two pathways together. With only a 1.3B-parameter LLM, JanusFlow outperforms earlier unified models and matches or beats several specialized systems on both understanding and generation. This makes it a compact, simple baseline for single-model multimodal work.

Key points

  • Generation benchmarks: MJHQ FID-30k 9.51, GenEval 0.63 and DPG-Bench 80.09%, ahead of SDv1.5 and SDXL.
  • Understanding benchmarks: MMBench 74.9, SeedBench 70.5 and GQA 60.3, above LLaVA-v1.5 and Qwen-VL-Chat.
  • Architecture and output: the backbone LLM has 1.3B parameters, and generated images are 384 × 384. Plain causal attention proved sufficient, since alternative masking schemes brought no gains.
  • Ablations: these ran at 256 × 256 for 50,000 iterations with a SigLIP-Large-Patch/16 understanding encoder. Removing representation alignment worsened FID and CLIP scores. A shared ConvNeXt encoder (Transfusion-style) underperformed decoupled encoders. Task-specific models trained on the same data were only marginally better.
  • Code: released at github.com/deepseek-ai/Janus.
