Graph-Assisted Large Language Models: A Perspective on Mitigating Intrinsic Limitations

Paper · 2026 · Haitong Luo, Fali Wang, Weiyao Zhang et al.

Summary

This survey asks how graph structures can offset three built-in weaknesses of large language models. The first is knowledge: static training leads to outdated facts, errors, and unwanted memorization. The second is reasoning: token-by-token generation produces linear chains that cannot branch or backtrack. The third is collaboration: routing among experts or agents is often rigid or poorly chosen. The authors argue that graphs fit each problem. Knowledge graphs offer dense, structured facts. Graph-shaped reasoning traces can be revisited and merged. Collaboration graphs let experts or agents be organized adaptively. They describe this as the first review organized around LLM deficits, rather than around using LLMs for graph tasks or around a single theme such as Graph RAG. The work groups representative methods into a five-part taxonomy, extracts shared design patterns, and surveys applications in biomedicine, science, software engineering, and hallucination control. It ends with open problems. For practitioners, it serves as a structured map for choosing graph-based remedies for specific LLM failures.

Key points

  • The taxonomy has five paradigms:
    • Parametric knowledge augmentation: KG-driven injection, editing, and unlearning, e.g., KG-SFT, GLAME, FaithUn, PISTOL.
    • Non-parametric augmentation: graph-based external RAG and internal memory, e.g., GraphRAG, HippoRAG, LightRAG, RoG, ToG, Zep, A-Mem.
    • Post-inference validation and correction: e.g., GraphCheck, KGR, CoG.
    • Graph-structured reasoning and planning: e.g., ToT, GoT, HuggingGPT, AFlow.
    • Graph-assisted collaboration: covers both MoE and MAS.
  • On the MoE side, graph-based routing in GraphLoRA, GraphRouter, and GraphMOE treats experts as nodes connected by message passing, instead of as independent units. Lancet addresses communication cost at the system level.
  • MAS methods fall into three groups by goal:
    • Performance: DAG-based, topology-learning, evolutionary, RL-based, and hypergraph approaches, e.g., G-Designer, GPTSwarm.
    • Efficiency: Agent-Prune, AgentDropout, AgentBalance.
    • Robustness: e.g., G-Safeguard.
  • The authors list several open challenges:
    • lightweight parametric editing;
    • automatic construction of reliable graphs from raw text;
    • evaluation of the reasoning process, not only final accuracy;
    • communication overhead in large multi-agent systems;
    • the absence of standard benchmarks.
  • The paper appeared in Findings of ACL 2026, pp. 18936–18955. It comes from ICT CAS, Penn State, Microsoft, and partner institutions, and links to a curated list of the papers it covers.
