KG-Agent: An Efficient Autonomous Agent Framework for Complex Reasoning over Knowledge Graph
Paper · 2025 · Jinhao Jiang, Kun Zhou, Wayne Xin Zhao et al.
Summary
Large language models struggle with multi-hop, knowledge-heavy questions when they rely only on their parameters. Existing methods that combine LLMs with knowledge graphs usually follow fixed, hand-designed interaction plans and depend on closed APIs such as ChatGPT or GPT-4. KG-Agent addresses both problems. A small open model, LLaMA2-7B, decides on its own which operation to perform at each step. It works with a toolbox of KG functions, an executor that runs the chosen calls on the graph, and a knowledge memory that stores the question, the program history and the current KG information.
The training data was not distilled from GPT-4. Instead, the authors took annotated queries from existing KGQA datasets, grounded them as query graphs and traversed these with BFS to obtain reasoning chains. They then turned the chains into step-by-step code programs and converted each step into an instruction example. With only about 10K such examples, the tuned model beats baselines that use larger LLMs or full training sets, on both KGQA and open-domain QA. This shows that capable KG agents can run on small open models.
Key points
- Toolbox: The tools fall into three groups.
- Extraction: five tools, including get_relation, get_head_entity/get_tail_entity and get_entity_by_type/get_entity_by_constraint.
- Logic: count, intersect, union, judge and end.
- Semantic: retrieve_relation and disambiguate_entity.
- Training data and speed: The model is tuned on 10K synthesized samples, roughly 22.6% of the size of GrailQA. Inference is reported to be about 3× faster than StructGPT.
- Reported gains:
- 7.5% relative F1 improvement on CWQ over ReasoningLM.
- 8.5% relative accuracy improvement on TQ-Wiki over BART-Large.
- Comparison with other approaches (Table 7): KG-Agent with LLaMA2-7B scores 81.0 on WebQSP and 69.8 on CWQ, compared with 70.8 and 56.2 for RoG with ChatGPT.
- Other base models: Swapping the backbone for Phi2-3B, Mistral-7B, CodeLLaMA-7B or LLaMA3-7B also works. LLaMA3-7B gives the best results (83.5 / 72.1), and the 3B model performs somewhat worse.
