UI-Copilot: Advancing Long-Horizon GUI Automation via Tool-Integrated Policy Optimization

Paper · 2026 · Zhengxi Lu, Fei Tang, Guangyi Liu et al.

Summary

Multimodal GUI agents perform well on short mobile tasks but break down on long, memory-heavy ones. Existing 7B models lose about 90.9% of their accuracy on MemGUI-Bench. The authors trace these failures to three causes: forgetting earlier observations, losing track of task progress, and making arithmetic mistakes.

UI-Copilot addresses this by splitting the work. A Qwen2.5VL-7B policy agent keeps only short progress summaries in its dialogue history and saves its detailed reasoning to an external store. When a task needs it, the agent calls a Qwen3-4B copilot in one of two roles:

  • Retriever: recalls stored facts.
  • Calculator: writes Python code that is then executed.

Training starts with SFT on AndroidControl trajectories that GPT-4o enriched with tool calls, thoughts and summaries. It continues with TIPO, an RL method that trains tool selection from single-turn predictions and trains actions through on-policy multi-turn rollouts.

The resulting UI-Copilot-7B is state of the art on MemGUI-Bench, ahead of GUI-Owl-7B and UI-TARS-1.5-7B. It also gains 17.1 points on AndroidWorld. This shows that calling helpers only when needed is a cheap alternative to fixed multi-agent pipelines.

Key points

  • Architecture: the policy is Qwen2.5VL-7B and the copilot is Qwen3-4B. Among the copilots tested, Qwen3-4B beat Qwen3-0.6B, Qwen3-1.7B and Qwen2.5VL-7B.
  • Memory decoupling: the "multi-turn summary" rollout format gave higher accuracy in fewer steps than Action–Thought and full multi-turn context formats.
  • Results:
    • AndroidWorld accuracy reaches 39.1%, a 17.1-point absolute gain over base Qwen.
    • In ablations, the full tool set reaches 51.5% average accuracy with 16.6 average steps.
    • The full tool set comes close to a workflow that calls the copilot at every step.
  • TIPO ablations:
    • SFT is essential as a cold start.
    • On-policy histories outperform expert histories for action learning.
    • A 600:2000 split between the action-RL and tool-RL datasets worked best.
  • Limitation: only two tools are supported (Retriever, Calculator). Web search and visual cropping are left for future work.
