Experience-driven Multi-turn Reinforcement Learning for GUI Agents

Paper · 2026 · Zhengxi Lu, Jiabo Ye, Fei Tang et al.

Summary

Training vision-based GUI agents for long, multi-step tasks involves a trade-off. Single-turn RL methods such as GRPO learn from expert histories, but at deployment the agent must rely on its own past actions, so training and real use differ. Online multi-turn RL closes this gap, but it brings sparse rewards, high engineering costs and unstable environments. The authors propose EMPO (Experience-driven Multi-turn Policy Optimization), which replaces the live device with pre-recorded expert trajectories. Screenshots from these trajectories act as fixed environment states. The policy writes its own reasoning and actions into the history. When the policy's action matches the expert step, the rollout moves on. When it diverges, a Patch Module inserts a corrected step so the rollout can continue on-policy. Optimization uses discounted future rewards and combines step-level and episode-level advantages. The authors also introduce AC-Real, an offline multi-turn metric that closely tracks live AndroidWorld results. Starting from Qwen2.5VL-7B and using only 1K public trajectories, the resulting UI-S1-7B model is competitive with UI-TARS-7B and GPT-4o. This suggests multi-turn RL can be done cheaply and without online interaction.

Key points

  • UI-S1-7B, trained from Qwen2.5VL-7B on about 1K trajectories, improves over its base by +12.0 on AndroidWorld and +23.8 on AITW. Single-turn skills also improve slightly: +1.9 on SS-Pro and +7.1 on GUI Odyssey.
  • AC-Real (AndroidControl-Real) correlates with AndroidWorld at R²=0.934. By comparison, AC-High reaches 0.470 and GUI Odyssey 0.398.
  • In the ablation study, the on-policy thought patch with ϵ=∞ performs best (AndroidWorld SR 34.5). Removing multi-turn rollout cuts SR to 18.6, and removing step-level advantages cuts it to 21.3.
  • EMPO's gains over the Qwen2.5-VL baseline grow as model size increases from 3B to 32B. Performance also follows an exponential scaling law with data size.
  • Stated limitation: most training trajectories have 5–15 steps, so tasks longer than 20 steps and tasks requiring long memory remain hard. Code is released in the X-PLUG/MobileAgent repository (UI-S1).
