Leveraging Outline-Optimized Generative Interactions and Critique for Self-Refining Outlines with Reinforcement Learning
Paper · 2026 · Hengwei Liu, Haoyuan Ma, Qingqing Lyu et al.
Summary
Small language models struggle to produce hierarchical outlines for Wikipedia-style expository articles. Their outlines tend to skip levels, omit important branches and distribute depth poorly. Existing remedies such as STORM, OmniThink or RAPID rely on costly multi-turn LLM interaction or fixed refinement procedures, so the critique behaviour they use cannot be learned. LOGIC-RL addresses this by distilling a teacher's refinement experience into a small student.
The teacher, DeepSeek-R1, runs the Logic interaction protocol on FreshWiki topics. Each run yields a triplet: a draft outline, structured feedback and a revised outline. The teacher also writes two-stage reasoning traces, one diagnosing defects and one explaining the revision. An LLM judge filters these data for quality.
Qwen3 students (0.6B and 1.7B) are trained in two steps: SFT as a cold start, then GRPO with format, structure and quality rewards. On FreshWiki and WikiOutline, the trained models clearly beat direct generation and refinement baselines. Better outlines also produce better downstream articles. This shows that compact models can acquire planning and self-critique skills when compute is limited.
Key points
- Rubric gains: Average rubric scores rise by 79.17% (relative) for the 0.6B model and by 8.67% for the 1.7B model over the strongest prior methods. The rubric assesses seven criteria, namely Coverage, Depth, Breadth, Logicality, Organization, Relevance and Interest.
- Iterative refinement: Repeated refinement helps up to about three rounds and then degrades. At three steps, Qwen3-0.6B-RL reaches a peak Heading Soft Recall of 87.77 on FreshWiki.
- Reward ablation: Replacing the exponential quality reward with a linear one still beats SFT. The original multiplicative, exponentially scaled reward scores highest overall.
- Downstream articles: Articles are written by GPT-4o-mini from each model's outlines and judged with Prometheus. Scores rise from Base to SFT to RL: 1.66 → 1.88 → 2.20 for 0.6B and 3.59 → 4.37 → 4.47 for 1.7B.
- Limitations: The method depends on a strong teacher, the dataset covers limited domains, and the evaluation is rubric-based, so the authors present results as comparative rather than absolute.
