Protecting Privacy in Multimodal Large Language Models with MLLMU-Bench
Paper · 2025 · Zheyuan Liu, Guangyao Dou, Mengzhao Jia et al.
Summary
Large generative models trained on web-scale data can memorize personal details and later reveal them. Machine unlearning has been studied for text-only LLMs, but multimodal models (MLLMs) are harder: knowledge about a person is spread across images and text, so removing it from one modality may leave it recoverable through the other. The authors present MLLMU-Bench, a benchmark for evaluating privacy-oriented unlearning in MLLMs. It combines synthetic personal profiles generated with GPT-4o, paired with StyleGAN face images, and human-verified profiles of real celebrities. A model is first fine-tuned on the profiles and then asked to forget a subset. Evaluation covers three properties: how well the target data is forgotten, whether forgetting generalizes to paraphrased questions and altered images, and how much general utility is preserved. Tests use classification, generation and cloze formats with either image+text or text-only input. Baseline experiments show that text-only unlearning works better on generation and cloze tasks, while multimodal unlearning wins on multimodal classification. Stronger forgetting consistently reduces utility. This points to the need for unlearning methods designed with both modalities in mind.
Key points
- Dataset scale: MLLMU-Bench has 653 profiles (500 fictitious, 153 real celebrities from CelebA), 20,754 questions and 1,153 images. The profiles cover 70 countries, 240 regions and 145 occupations.
- Question design: Each profile has 14 questions, 7 multimodal and 7 text-only.
- Data splits: The benchmark has four sets: Forget, Retain, Test and Real Celebrity. The forget split covers 5%, 10% or 15% of the fictitious profiles. The Test Set contains 3.5K paraphrased questions and 500 pose-altered faces produced with Arc2Face.
- Baselines: Four unlearning methods were tested (GA, Gradient Difference, KL Minimization, NPO) plus one prompting approach, on two base MLLMs including LLaVA.
- Trade-off results: GA forgets most aggressively but sharply reduces utility, measured by Retain accuracy, celebrity accuracy, MMMU and LLaVA-Bench. NPO and prompting preserve retained knowledge best. Code is available at franciscoliu/MLLMU-Bench.
