Middle-Layer Representation Alignment for Cross-Lingual Transfer in Fine-Tuned LLMs

Paper · 2025 · Danni Liu and Jan Niehues

Summary

LLMs are usually fine-tuned on task data in only a few languages, so quality elsewhere depends on cross-lingual transfer, which is especially difficult for generative tasks. The authors first probe Llama 3 (8B-Instruct) and Qwen 2.5 (7B-Instruct) using translation retrieval on FLORES-200, with mean-pooled activations taken from each layer. Cross-language alignment turns out to be weak overall and poorest for low-resource languages, with a peak in the middle layers. Alignment at those layers predicts how well a language benefits from fine-tuning, yet standard fine-tuning leaves it unchanged. The proposed fix adds a contrastive loss on middle-layer sentence representations of parallel pairs, alternating step by step with the normal causal LM task loss. The method was tested on slot filling (MASSIVE), machine translation (ALMA training data, WMT 23 test) and JSON generation (UNER). It improves transfer, mostly for lower-resource languages, and also helps languages absent from the alignment data. Alignment modules trained separately can be merged into existing task models afterward. In practice, a few hundred parallel sentences can cheaply extend a fine-tuned model to more languages.

Key points

  • The diagnostic covers 35 languages and 1,190 directions on FLORES-200. Average retrieval accuracy stays below 50%, with Llama 3 ahead of Qwen 2.5. Middle-layer retrieval accuracy correlates with downstream slot-filling transfer at 0.56 for Llama 3 and 0.70 for Qwen 2.5 (p < 0.01).
  • Slot-filling setup: training on MASSIVE in {ar, en, es, ru, zh}, evaluation on 25 additional languages, and alignment pairs drawn from Tatoeba at low, mid and high resource levels.
  • MT setup: training on ALMA in {cs, de, is, ru, zh}↔en and testing on WMT 23. The test also includes the unseen directions {he, ja, uk}↔en, which makes the paper directly relevant to Ukrainian.
  • Gains depend on resources and script. A few hundred parallel sentences per language are enough, and they can come from a different domain than the task. Improvements are smaller for non-Latin scripts, which the authors attribute to tokenization effects on mean pooling.
  • The method has costs. Alternating training doubles fine-tuning compute, and on structured JSON generation supervised F1 can drop by 1.0. Code is available at github.com/dannigt/mid-align.
