Personal LLM Agents: Insights and Survey about the Capability, Efficiency and Security

Paper · 2024 · Yuanchun Li, Hao Wen, Weijun Wang et al.

Summary

The paper looks at why today's phone and smart-device assistants, such as Siri, Google Assistant and Alexa, remain narrow. They rely on hand-crafted rules or on learning from demonstrations and rewards, and they understand user intent poorly. The authors argue that LLM-based agents could fix this if they are tightly connected to a user's own data, apps and devices. They call these Personal LLM Agents. The work is a position paper and survey, not an experimental study.

The authors first collected views from 25 industry experts working on assistants and on-device LLMs. From this input they derived a generic agent architecture and a five-level intelligence scale. They then reviewed the literature along three axes: core capabilities, efficiency on resource-limited hardware, and security/privacy.

The main contribution is a structured roadmap. It identifies a basic conflict between the large models needed for good quality and the limits on compute, privacy and safety in personal settings. This makes the paper a useful map for anyone building assistants that run on or near user devices.

Key points

  • Team and source: Tsinghua AIR led the work, with industry partners including Xiaomi, Huawei, vivo and Li Auto. A companion repository is at github.com/MobileLLM/Personal_LLM_Agents_Survey.
  • Expert input and levels: 25 senior architects, directors and researchers were consulted. The resulting L1–L5 levels are modeled on the autonomy grades used for self-driving cars.
  • Capabilities: The survey covers task execution (automation methods, agent frameworks, evaluation), context sensing (sources and targets) and memory (how it is acquired, managed and used).
  • Efficiency: Topics include model compression, faster inference, lower memory use and energy savings. It also covers cheap customization through context loading and fine-tuning, plus efficient memory search and workflow optimization.
  • Security and privacy: The survey treats confidentiality (local or secure remote processing, data masking, information flow control) and integrity (adversarial, backdoor and prompt injection attacks). It also covers reliability, where the open issues are trustworthy benchmarks, rule-based safeguards and LLM interpretability.

Our summary of the paper, in our own words — not its text. The work belongs to its authors; read it at the links above.
