Deep Model Fusion: A Survey

Paper · 2023 · Weishi Li, Yong Peng, Miao Zhang et al.

Summary

This survey covers deep model fusion: merging the weights or outputs of several neural networks into one model that performs better than any single member. Running many models at inference is costly, especially at LLM scale, and trained solutions tend to sit near the edge of flat low-loss regions rather than at their centre. The authors propose a four-part taxonomy. Mode connectivity finds low-loss paths between solutions. Alignment matches neurons across networks so they can be merged. Weight average combines parameters directly. Ensemble learning aggregates predictions. For each family, they compare strengths and weaknesses, explain how the families relate, and review applications in federated learning, fine-tuning, distillation and foundation models/LLMs. They conclude that weight averaging remains the dominant approach because it is simple and cheap. Ensembles are still widely used despite their inference cost. The main open problems are computational load, heterogeneous architectures and slow combinatorial alignment. The survey is a useful map for anyone combining fine-tuned checkpoints, such as language-specific NLP models.

Key points

  • Mode connectivity is split into three types: linear (LMC), non-linear, and subspace. Path forms include line segments, polygonal chains, quadratic Bezier curves and Fourier-series curves.
  • Alignment is divided into activation matching (uses data) and weight matching (data-free). Re-basin uses permutation invariance to move solutions into a single basin. Graph-matching memory costs limit its scalability.
  • Weight averaging methods covered include model soup, model/task arithmetic and SWA. Model reuse is discussed as an extension of ensembling.
  • LLM-related work includes:
    • B-tuning and Zoo-tuning
    • fusion-in-decoder (FiD) and Summa Fusion
    • LLM-BLENDER, which ranks candidate outputs with PairRanker
    • LoRAHub, which combines task-specific LoRA modules
    • Branch-Train-Merge (BTM)
  • Detoxification example: subtracting a negative task vector cut toxic generations in GPT-2 from 4.8% to 0.8%.
