L4Q: Parameter Efficient Quantization-Aware Fine-Tuning on Large Language Models
Paper · 2025 · Hyesung Jeon, Yulhwa Kim and Jae-Joon Kim
Summary
Compressing LLMs with quantization and adapting them with parameter-efficient fine-tuning usually happen in two separate steps. A post-training quantization method such as GPTQ is applied first, and LoRA adapters are then trained on the frozen low-bit weights. This split limits accuracy recovery. It also often leaves high-precision adapters alongside the low-bit weights, so inference runs on a mixed-precision model.
The authors propose L4Q, which merges quantization-aware training (QAT) with LoRA:
- The LoRA update is added to the base weights before quantization, so the result is a fully quantized model.
- The quantization scale and zero-point are learned jointly with the LoRA matrices.
- A custom backward pass avoids storing full weight gradients, keeping memory use close to ordinary LoRA.
They evaluate on OpenLLaMA, LLaMA-1/2/3 and Mistral models fine-tuned on instruction data. L4Q generally beats the decoupled baselines, with the largest gains at 3-bit precision. This makes accurate, cheap-to-train, fully low-bit models more practical.
Key points
- Memory cost of standard QAT: it needs roughly 80GB of memory even for a 7B model, because weight gradients and optimizer states must be stored. L4Q's layer design removes this overhead.
- Baselines: GPTQ, OmniQuant, LoftQ, QLoRA, QA-LoRA and QAT-LoRA, a variant that keeps quantization and LoRA parameters decoupled.
- Benchmarks: CSQA, plus MMLU in 0-shot and 5-shot settings.
- 3-bit results:
- On LLaMA-2 7B, L4Q reaches 61.3 on CSQA, against 57.6 for QLoRA and 56.3 for QA-LoRA (the pre-trained model scores 61.9).
- On Mistral-v0.1 7B, L4Q gets 56.2 on MMLU 5-shot, against 53.6 for QLoRA.
- Inference efficiency: unlike QLoRA, LoftQ and QAT-LoRA, L4Q yields fully quantized weights. QA-LoRA also does, but only by restricting the LoRA structure, which limits how well it can fine-tune.
